Benchmarking LiDAR Sensors for Development and Evaluation of Automotive Perception
Environment perception and representation are some of the most critical tasks
in automated driving. To meet the stringent needs of safety standards such as
ISO 26262 there is a need for efficient quantitative evaluation of the
perceived information. However, to use typical methods of evaluation, such as
comparing using annotated data, is not scalable due to the manual effort
involved.
There is thus a need to automate the process of data annotation. This paper
focuses on the LiDAR sensor and aims to identify the limitations of the sensor
and provides a methodology to generate annotated data of a measurable quality.
The limitations with the sensor are analysed in a Systematic Literature Review
on available academic texts and refined by unstructured interviews with
experts.
The main contributions are 1) the SLR with related interviews to identify
LiDAR sensor limitations and 2) the associated methodology which allows us to
generate world representations
Weather Influence and Classification with Automotive Lidar Sensors
Lidar sensors are often used in mobile robots and autonomous vehicles to
complement camera, radar and ultrasonic sensors for environment perception.
Typically, perception algorithms are trained to only detect moving and static
objects as well as ground estimation, but intentionally ignore weather effects
to reduce false detections. In this work, we present an in-depth analysis of
automotive lidar performance under harsh weather conditions, i.e. heavy rain
and dense fog. An extensive data set has been recorded for various fog and rain
conditions, which is the basis for the conducted in-depth analysis of the point
cloud under changing environmental conditions. In addition, we introduce a
novel approach to detect and classify rain or fog with lidar sensors only and
achieve an mean union over intersection of 97.14 % for a data set in controlled
environments. The analysis of weather influences on the performance of lidar
sensors and the weather detection are important steps towards improving safety
levels for autonomous driving in adverse weather conditions by providing

LiDAR Snowfall Simulation for Robust 3D Object Detection
3D object detection is a central task for applications such as autonomous
driving, in which the system needs to localize and classify surrounding traffic
agents, even in the presence of adverse weather. In this paper, we address the
problem of LiDAR-based 3D object detection under snowfall. Due to the
difficulty of collecting and annotating training data in this setting, we
propose a physically based method to simulate the effect of snowfall on real
clear-weather LiDAR point clouds. Our method samples snow particles in 2D space
for each LiDAR line and uses the induced geometry to modify the measurement for
each LiDAR beam accordingly. Moreover, as snowfall often causes wetness on the
ground, we also simulate ground wetness on LiDAR point clouds. We use our
simulation to generate partially synthetic snowy LiDAR data and leverage these
data for training 3D object detection models that are robust to snowfall. We
conduct an extensive evaluation using several state-of-the-art 3D object
detection methods and show that our simulation consistently yields significant
performance gains on the real snowy STF dataset compared to clear-weather
baselines and competing simulation approaches, while not sacrificing
performance in clear weather. Our code is available at

LiDAR-based Weather Detection: Automotive LiDAR Sensors in Adverse Weather Conditions
Technologische Verbesserungen erhöhen den Automatisierungsgrad von Fahrzeugen. Der natürliche Schritt ist dabei, den Fahrer dort zu unterstützen, wo er es am meisten wünscht: bei schlechtem Wetter. Das Wetter beeinflusst alle Sensoren, die zur Wahrnehmung der Umgebung verwendet werden, daher ist es entscheidend, diese Effekte zu berücksichtigen und abzuschwächen.
Die vorliegende Dissertation konzentriert sich auf die gerade entstehende Technologie der automobilen Light Detection and Ranging (LiDAR)-Sensoren und trägt zur Entwicklung von autonomen Fahrzeugen bei, die in der Lage sind, unter verschiedenen Wetterbedingungen zu fahren.
Die Grundlage ist der erste LiDAR-Punktwolken-Datensatz mit dem Schwerpunkt auf schlechte Wetterbedingungen, welcher punktweise annonatatierte Wetterinformationen enthält, während er
unter kontrollierten Wetterbedingungen aufgezeichnet wurde. Dieser Datensatz wird durch eine neuartige Wetter-Augmentation erweitert, um realistische Wettereffekte erzeugen zu können.
Ein neuartiger Ansatz zur Klassifizierung des Wetterzustands
und der erste CNN-basierte Entrauschungsalgorithmus werden entwickelt. Das Ergebnis ist eine genaue Vorhersage des Wetterstatus und eine Verbesserung der Punktwolkenqualität.
Kontrollierte Umgebungen unter verschiedenen Wetterbedingungen ermöglichen die Evaluierung der oben genannten Ansätze und liefern wertvolle Informationen für das automatisierte und autonome Fahren
Performance of Sensor Fusion for Vehicular Applications
Sensor fusion is a key system in Advanced Driver Assistance Systems, ADAS. The perfor-mance of the sensor fusion depends on many factors such as the sensors used, the kinematicmodel used in the Extended Kalman Filter, EKF, the motion of the vehicles, the type ofroad, the density of vehicles, and the gating methods. The interactions between parametersand the extent to which individual parameters contribute to the overall accuracy of a sensorfusion system can be difficult to assess.In this study, a full-factorial experimental evaluation of a sensor fusion system basedon a real vehicle was performed. The experimental results for different driving scenariosand parameters are discussed and the factors that make the most impact are identified.The performance of sensor fusion depends on many factors such as the sensors used, thekinematic model used in the Extended Kalman Filter (EKF) motion of the vehicles, type ofroad, density of vehicles, and gating methods.This study identified that the distance between the vehicles has the largest impact on theestimation error because the vision sensor performs poorly with increased distance. In addi-tion, it was identified that the kinematic models had no significant impact on the estimation.Last but not least, the ellipsoid gates performed better than rectangular gates.In addition, we propose a new gating algorithm called an angular gate. This algorithmis based on the observation that the data for each target lies in the direction of that target.Therefore, the angle and the range can be used for setting up a two-level gating approachthat is both more intuitive and computationally faster than ellipsoid gates. The angulargates can achieve a speedup factor of up to 2.27 compared to ellipsoid gates.Furthermore, we provide time complexity analysis of angular gates, ellipsoid gates, andrectangular gates demonstrating the theoretical reasons why angular gates perform better.Last, we evaluated the performance of the Munkres algorithm using a full factorial designand identified that narrower gates can speedup the running time of the Munkres algorithmand, surprisingly, even improve the RMSE in some cases.The low target maneuvering index of vehicular systems was identified as the reason whythe kinematic models do not have an impact on the estimation. This finding supports the useof simpler and computationally inexpensive filters instead of complex Interacting MultipleModel filters. The angular gates also improve the computational efficiency of the overallsensor fusion system making them suitable for vehicular application as well as for embeddedsystems and robotics
Measurable Safety of Automated Driving Functions in Commercial Motor Vehicles
With the further development of automated driving, the functional performance increases resulting in the need for new and comprehensive testing concepts. This doctoral work aims to enable the transition from quantitative mileage to qualitative test coverage by aggregating the results of both knowledge-based and data-driven test platforms. The validity of the test domain can be extended cost-effectively throughout the software development process to achieve meaningful test termination criteria
Measurable Safety of Automated Driving Functions in Commercial Motor Vehicles - Technological and Methodical Approaches
Fahrerassistenzsysteme sowie automatisiertes Fahren leisten einen wesentlichen Beitrag zur Verbesserung der Verkehrssicherheit von Kraftfahrzeugen, insbesondere von Nutzfahrzeugen. Mit der Weiterentwicklung des automatisierten Fahrens steigt hierbei die funktionale Leistungsfähigkeit, woraus Anforderungen an neue, gesamtheitliche Erprobungskonzepte entstehen. Um die Absicherung höherer Stufen von automatisierten Fahrfunktionen zu garantieren, sind neuartige Verifikations- und Validierungsmethoden erforderlich.
Ziel dieser Arbeit ist es, durch die Aggregation von Testergebnissen aus wissensbasierten und datengetriebenen Testplattformen den Übergang von einer quantitativen Kilometerzahl zu einer qualitativen Testabdeckung zu ermöglichen. Die adaptive Testabdeckung zielt somit auf einen Kompromiss zwischen Effizienz- und Effektivitätskriterien für die Absicherung von automatisierten Fahrfunktionen in der Produktentstehung von Nutzfahrzeugen ab.
Diese Arbeit umfasst die Konzeption und Implementierung eines modularen Frameworks zur kundenorientierten Absicherung automatisierter Fahrfunktionen mit vertretbarem Aufwand. Ausgehend vom Konfliktmanagement für die Anforderungen der Teststrategie werden hochautomatisierte Testansätze entwickelt. Dementsprechend wird jeder Testansatz mit seinen jeweiligen Testzielen integriert, um die Basis eines kontextgesteuerten Testkonzepts zu realisieren. Die wesentlichen Beiträge dieser Arbeit befassen sich mit vier Schwerpunkten:
* Zunächst wird ein Co-Simulationsansatz präsentiert, mit dem sich die Sensoreingänge in einem Hardware-in-the-Loop-Prüfstand mithilfe synthetischer Fahrszenarien simulieren und/ oder stimulieren lassen. Der vorgestellte Aufbau bietet einen phänomenologischen Modellierungsansatz, um einen Kompromiss zwischen der Modellgranularität und dem
Rechenaufwand der Echtzeitsimulation zu erreichen. Diese Methode wird für eine modulare Integration von Simulationskomponenten, wie Verkehrssimulation und Fahrdynamik, verwendet, um relevante Phänomene in kritischen Fahrszenarien zu modellieren.
* Danach wird ein Messtechnik- und Datenanalysekonzept für die weltweite Absicherung von automatisierten Fahrfunktionen vorgestellt, welches eine Skalierbarkeit zur Aufzeichnung von Fahrzeugsensor- und/ oder Umfeldsensordaten von spezifischen Fahrereignissen einerseits und permanenten Daten zur statistischen Absicherung und Softwareentwicklung andererseits erlaubt. Messdaten aus länderspezifischen Feldversuchen werden aufgezeichnet und zentral in einer Cloud-Datenbank gespeichert.
* Anschließend wird ein ontologiebasierter Ansatz zur Integration einer komplementären Wissensquelle aus Feldbeobachtungen in ein Wissensmanagementsystem beschrieben. Die Gruppierung von Aufzeichnungen wird mittels einer ereignisbasierten Zeitreihenanalyse mit hierarchischer Clusterbildung und normalisierter Kreuzkorrelation realisiert. Aus dem extrahierten Cluster und seinem Parameterraum lassen sich die Eintrittswahrscheinlichkeit jedes logischen Szenarios und die Wahrscheinlichkeitsverteilungen der zugehörigen Parameter ableiten. Durch die Korrelationsanalyse von synthetischen und naturalistischen Fahrszenarien wird die anforderungsbasierte Testabdeckung adaptiv und systematisch durch ausführbare Szenario-Spezifikationen erweitert.
* Schließlich wird eine prospektive Risikobewertung als invertiertes Konfidenzniveau der messbaren Sicherheit mithilfe von Sensitivitäts- und Zuverlässigkeitsanalysen durchgeführt. Der Versagensbereich kann im Parameterraum identifiziert werden, um die Versagenswahrscheinlichkeit für jedes extrahierte logische Szenario durch verschiedene Stichprobenverfahren, wie beispielsweise die Monte-Carlo-Simulation und Adaptive-Importance-Sampling, vorherzusagen. Dabei führt die geschätzte Wahrscheinlichkeit einer Sicherheitsverletzung für jedes gruppierte logische Szenario zu einer messbaren Sicherheitsvorhersage.
Das vorgestellte Framework erlaubt es, die Lücke zwischen wissensbasierten und datengetriebenen Testplattformen zu schließen, um die Wissensbasis für die Abdeckung der Operational Design Domains konsequent zu erweitern.
Zusammenfassend zeigen die Ergebnisse den Nutzen und die Herausforderungen des entwickelten Frameworks für messbare Sicherheit durch ein Vertrauensmaß der Risikobewertung. Dies ermöglicht eine kosteneffiziente Erweiterung der Validität der Testdomäne im gesamten Softwareentwicklungsprozess, um die erforderlichen Testabbruchkriterien zu erreichen

Advancements in Point Cloud Data Augmentation for Deep Learning: A Survey
Point cloud has a wide range of applications in areas such as autonomous
driving, mapping, navigation, scene reconstruction, and medical imaging. Due to
its great potentials in these applications, point cloud processing has gained
great attention in the field of computer vision. Among various point cloud
processing techniques, deep learning (DL) has become one of the mainstream and
effective methods for tasks such as detection, segmentation and classification.
To reduce overfitting during training DL models and improve model performance
especially when the amount and/or diversity of training data are limited,
augmentation is often crucial. Although various point cloud data augmentation
methods have been widely used in different point cloud processing tasks, there
are currently no published systematic surveys or reviews of these methods.
Therefore, this article surveys and discusses these methods and categorizes
them into a taxonomy framework. Through the comprehensive evaluation and
comparison of the augmentation methods, this article identifies their
potentials and limitations and suggests possible future research directions.
This work helps researchers gain a holistic understanding of the current status
of point cloud data augmentation and promotes its wider application and
development
