Resilient Operational Planning for Microgrids Against Extreme Events
This paper proposes a novel resilience index, a microgrid survivability rate (SR) under extreme events, and then proposes a novel Resilient Operational Planning (ROP) algorithm to maximize the proposed resilience index SR. The proposed ROP algorithm can incorporate predetermined inverter failure probabilities and generate multiple scenarios accordingly to optimize resilient operations during an extreme event. The implemented ROP algorithm consists of two main steps: (i) optimization of resilient operational planning, and (ii) preventive resilience enhancement if minimum SR is not met per the analysis in step 1. A typical microgrid (MG) is studied to compare the proposed ROP algorithm against a traditional microgrid energy management (MEM) model. Results indicate that an enhanced resilience operation is achieved by the ROP algorithm, which is demonstrated by the quantification of resilience via the SR. Moreover, the proposed ROP algorithm is able to obtain a greater SR overall compared to that achieved by the traditional MEM, and this benefit of using the proposed ROP increases as the inverter failure probabilities increase
Enhancing the drilling efficiency through the application of machine learning and optimization algorithm.
This article presents a novel Artificial Intelligence (AI) workflow to enhance drilling performance by mitigating the adverse impact of drill-string vibrations on drilling efficiency. The study employs three supervised machine learning (ML) algorithms, namely the Multi-Layer Perceptron (MLP), Support Vector Regression (SVR), and Regression Decision Tree (DTR), to train models for bit rotation (Bit RPM), rate of penetration (ROP), and torque. These models combine to form a digital twin for a drilling system and are validated through extensive cross-validation procedures against actual drilling parameters using field data. The combined SVR - Bit RPM model is then used to categorize torsional vibrations and constrain optimized parameter selection using the Particle Swarm Optimisation block (PSO). The SVR-ROP model is integrated with a PSO under two constraints: Stick Slip Index (SSI<0.05) and Depth of Cut (DOC<5 mm) to further improve torsional stability. Simulations predict a 43% increase in ROP and torsional stability on average when the optimized parameters WOB and RPM are applied. This would avoid the need to trip in/out to change the bit, and the drilling time can be reduced from 66 to 31 hours. The findings of this study illustrate the system's competency in determining optimal drilling parameters and boosting drilling efficiency. Integrating AI techniques offers valuable insights and practical solutions for drilling optimization, particularly in terms of saving drilling time and improving the ROP, which increases potential savings

Application of statistical learning models to predict and optimize rate of penetration of drilling
Modeling the rate of penetration of the drill bit has been essential to optimizing drilling operations. Optimization of drilling – a cost intensive operation in the oil and gas industry– is essential, especially during downturns in the oil and gas industry. This thesis evaluates the use of statistical learning models to predict and optimize ROP in drilling operations.
Statistical Learning Models can range from simple models (linear regression) to complex models (random forests). A range of statistical learning models have been evaluated in this thesis in order to determine an optimum method for prediction of rate of penetration (ROP) in drilling.
Linear techniques such as regression have been used to predict ROP. Special linear regression models such as lasso and ridge regression have been evaluated. Dimension reduction techniques like principal components regression are evaluated for ROP prediction. Non-linear algorithms like trees have been introduced to address the low accuracy of linear models. Trees suffer from low accuracy and high variance. Trees are bootstrapped and averaged to create the random forests algorithm. Random forests algorithm is a powerful algorithm which predicts ROP with high accuracy.
A parametric study was used to determine the ideal training sets for ROP prediction. It was conclude that data within a formation forms the best training set for ROP prediction. Parametric analysis of the length of the training set revealed that 20% of the formation interval depth was enough to train an accurate predictor for ROP.
The ROP model built using statistical learning models were then used as an equation to optimize ROP. An optimization algorithm was used to compute ideal values of input feature to improve ROP in the test set. Surface controllable input features were varied in an effort to improve ROP. ROP was improved to save a predicted total of 22 hours of active drilling time using this method.
This thesis introduces statistical learning techniques for predicting and optimizing ROP during drilling. These methods use input data to model ROP. Input features (surface parameters which are controllable on the rig) are then changed to optimize ROP. NCS Drilling Data Based ROP Modelling and its Application
Master's thesis in Petroleum engineeringPredicting the ROP (rate of penetration) before drilling is essential to improve the overall drilling efficiency and thereby reduce the non-productive time and costs. For this, good ROP model is required. Several ROP models are available in the industry which is derived based on both mechanistic and empirical methods. However, each model has its strengths and shortcomings.
In this thesis, five ROP modelling workflows are used to model field data. These are the methods of multiple regression, least squares, MSE, D-exponent and the Warren model. The applicability and the limitations of the models are tested on nearby, distant and very distant field data in the North Sea. Six wells are used for the analysis located in the Alvheim, Kvitebjørn and Valhall fields.
During modelling, two hypotheses were tested. One common observation from the result is that the model application is limited within the same block, where the lateral geology expected to be similar. Based on the assessment of the results, applicability and limitations of the five modelling techniques are summarized. In addition to the overall study, an optimization procedure is also developed
A review on half a century of experience in rate of penetration management: Application of analytical, semi-analytical and empirical models
Rate of penetration management is a matter of importance in drilling operations and it has been used in some research studies. Although conventional approaches for rate of penetration management are mainly focused on analytical and semi-analytical models, several correlations have also been developed for this purpose. The history of rate of penetration management studies extends back more than half a century and ever since, research interest in this concept has never declined, making it a focus of industry and academic studies. In this article, some of these studies are reviewed to achieve a better understanding of rate of penetration management concept, its financial benefits and also its research capacities. This review reveals the most common rate of penetration management methods which applied analytical, semi-analytical and empirical correlations in different fields around the world. In other words, the main purpose of this study is to evaluate the research studies in which different models and correlations have been used as the main approach for rate of penetration management. Ormen Lange 6305/7 drilling data based ROP modelling and its application
Master's thesis in Petroleum engineeringDuring design and planning phase, determination of the accurate rate of penetration (ROP) is essential for efficient drilling operations. Optimized ROP predictions improve the drilling efficiency in terms of decreasing operation time per drilling depth and hence lowering the drilling cost. Thus, the application of the best ROP modelling procedure is crucial.
This thesis work presents a total of four different ROP modelling techniques, which are applied and tested on three wells in the Ormen Lange field. The modelling methods are the multiple linear regression, mechanical specific energy (MSE) model, d-exponent model and Warren model. The modelling approaches used were based on the whole well data and similar geologically grouped based data. The applicability of the models was tested only on the near-by wells, but not on far-away ones from the considered block.
ROP modelling of old well’s drilling data and testing the model on the near-by wells showed that the stratigraphic groups-based modelling approach provides the best fit results with the field data and predicts the near-by well’s ROP data quite good. Moreover, this thesis work developed and illustrated a step-by-step process for ROP optimization in terms of modelling of drilled well’s data and its application for the near-by well to be drilled

End-to-end drilling optimization using machine learning
Drilling costs occupy a significant portion of oil and gas project’s budget. Optimization of drilling - increasing speed, reducing vibrations, and minimizing borehole instability - can lead to significant savings and hence have been extensively studied. Currently, most drilling optimization tools (or models) only tackle a single drilling metric: they seek to optimize either the rate of penetration (ROP), torque on bit (TOB), mechanical specific energy (MSE) or drilling vibrations. Models are often built independent of other metrics (without coupling) and do not accurately represent downhole conditions since drilling metrics are interrelated. This may lead to over or underestimation of the metric optimized which can severely reduce the effect of optimization. The objective of this dissertation is to introduce techniques, strategies, and algorithms that can be used to build a fully coupled drilling optimization model. Drilling optimization is studied by first optimizing ROP– where models for ROP prediction and inference are constructed using machine learning. Strategies and algorithms for determining optimal drilling parameters using ROP models are discussed. The unique problem posed by data-driven models are solved using meta-heuristic algorithms. A coupled model is constructed by building ROP, TOB, and MSE models conjointly using the random forests algorithm. Drilling vibrations – axial, lateral, and torsional – are modeled using a machine learning classification algorithm. This classification algorithm used to restrict the optimization space, ensuring that optimal parameters do not induce vibrations ahead of the bit. This model is used to investigate the effect of optimizing ROP and MSE on field data. A workflow is introduced linking all the aforementioned models into an end-to-end drilling optimization tool. The tool can be used as a recommendation system where field-measured data are used to determine and implement optimal drilling parameters ahead of the bit. Penetration Rate Optimization With Support Vector Regression Method

Bu talep artışını karşılamak amacıyla daha önce araştırma yapılmamış yeraltı derinliklerinde ve su derinliğinin 3000 metreyi bulduğu açık denizlerde yeni kaynak araştırmaları devam etmektedir. Bu araştırma giderlerinin büyük bir çoğunluğunu sondaj operasyonları oluşturmaktadır. Doğası gereği, sondaj esnasında kulenin ve sondaj dizisinin en çok aşınmaya uğrayan, çabuk eskiyip değiştirilmesine ihtiyaç duyulan elemanı matkaptır. Sondajın metraj veya perfornas maliyetini düşürmek için bir matkabın hem uzun süre çalışması, hem de iyi iş yapması istenir. Matkap çalıştıkça aşınacağı için ilerleme hızı azalır ve sondaj maliyeti artmaya başlar. Bu sebepten dolayı, matkabın aşınma durumunun dikkatle takip edilmesi gerekmektedir. Eğer matkap zamanından önce kuyudan çıkarılırsa, başka kuyularda tekrar kullanılma özelliğini çoğunlukla kaybeder. Eğer matkap fazla aşınır ve bu durum fark edilmezse, bazı kısımları (diş, kon, vs.) parçalanarak kuyunun içinde kalır. Bu kalan parçalar çıkarılıp kuyu temizlenmeden sondaja devam edilemeyeceği için tahlisiye olarak adlandırılan kurtarma operasyonlarının yapılmasını zorunlu kılar. Bu durum, zaman ve para kaybına yol açtığı gibi tahlisiye operasyonunun yüzde yüz başarı ile gerçekleşeceğinin garantisi de yoktur. Sondaj esnasındaki ilerleme hızı birçok parametreye bağlıdır. Bu sebeple, ilerleme hızını tahmin veya optimize etmek oldukça karışıktır. Ancak yaygın optimizasyon yöntemleri kullanılarak, oyma dişli matkaplar için en iyi parametre kombinasyonlarının seçilmesiyle en düşük maliyeti oluşturan matematiksel modeller türetilmiştir. Bu matematiksel modellerden en kapsamlı ve en yaygın olanı Bourgoyne ve Young (BY) yöntemidir. BY yönteminde en iyi ilerleme hızını tahmin edebilmek için sekiz parametre içeren en az otuz girdi veri setine ihtiyaç vardır. Bu otuz veri seti, ya bir sahadaki otuz farklı kuyudan ayrı ayrı şeyl zonlarından alınmış olmalı ya da bir kuyuda otuz farklı derinlikteki şeyl noktalarından elde edilmiş olmalıdır. Herhangi bir sebeple elde yeterli veri olmadığı durumlarda BvY yönteminin doğruluğu azalmakta ve önemli hatalara yol açmaktadır. Bu nedenle, verinin yetersiz olduğu durumlarda alternatif yöntemler kullanılması zorunludur. Bu alternatif yöntemlerden en yaygın olanı, yapay öğrenme yöntemlerinin en etkililerinden biri olan Destek Vektör Regresyonu (DVR)'dur. DVR'nin ilerleme hızı tahmini problemine uygulanabilirliği literatürde ilk kez bu çalışma ile gösterilecektir. Bu çalışmada, ilerleme hızını tahmin etmek için iki farklı regresyon tekniği kullanılmıştır. İlk teknik, BvY'nin uyguladığı çoklu regresyon analizidir. İlerleme hızı probleminde bir bağımlı parametreyi tek bir bağımsız parametre ile bağdaştırmak mümkün değildir. Ayrıca, bu parametreler aynı zamanda birbirlerini de etkilemektedir. Bu nedenle, bu şekilde birden çok parametrenin bulunduğu durumlarda tekli regresyon analizi yapmak mümkün olmamaktadır. Çoklu regresyon analizi, parametrelerin birbirleri ile olan ilişkilerini çeşitli yöntemlerle belirleyip, her bir parametre için korelasyon katsayısı hesaplar. Daha sonra bu korelasyon katsayıları sayesinde tahmin modeli oluşturulur. Tahmin modeli oluşturulduktan sonra uygunluk katsayısı adı verilen R2 değeri hesaplanır. Bu sayede katsayıların geçerliliği ve modelin uygunluğu gözlemlenir. R2 değeri 1'e ne kadar yakınsa oluşturulan model o kadar geçerlidir. Çalışmada irdelenmiş olan ilerleme hızı probleminde birbiriyle ilişkili sekiz parametre bulunmaktadır. Her bir sekiz parametre için ise otuz adet veri seti vardır. Bu otuz veri seti, en küçük kareler yöntemi kullanılarak modellenir ve sekiz adet korelasyon katsayısı bulunur. İkinci teknik ise güçlü bir yapay öğrenme yöntemi olan Destek Vektör Makinesi (DVM)'nin regresyon modelidir. Büyük miktarlardaki verilerin elle işlenmesi ve analizinin yapılması mümkün değildir. Bu tür problemlere çözüm olması amacıyla yapay öğrenme (makine öğrenmesi) yöntemleri geliştirilmiştir. Bu yöntemler, eldeki (geçmiş) verileri kullanarak, bu verilere en uygun modeli bulmaya çalışırlar. Bu işleme, öğrenme işlemi adı verilir. Model oluşturulduktan sonra yeni gelen (gelecek) veriler, bu modele göre analiz edilip sonuç üretilir. Yapay öğrenme yöntemleri farklı uygulamalara, analizlere ve beklentilere göre gruplara ayrılır. Bu gruplardan en yaygın olanları sınıflandırma, kümeleme ve regresyondur. DVM, sınıflandırma konusunda kullanılan oldukça etkili ve basit yöntemlerden birisidir. DVM'de sınıflandırma işlemi için aynı düzlemde bulunan iki grup, aralarına bir sınır çekilerek birbirinden ayrılır. Sınırın çekileceği yer ise iki grubun da elemanlarına en uzak olan yer olması gerekmektedir. Bu işlem, iki gruba da yakın ve birbirine paralel iki sınır çizgisi çekilerek yapılır. Daha sonra bu sınır çizgileri birbirlerine yaklaştırılarak ortak sınır çizgisi üretilir. DVM'de sınıflandırma işlemi iki grup arasında yapılabileceği gibi ikiden çok grup arasında da yapılabilir. DVM'de regresyon ile sınıflandırma arasında matematiksel olarak çok fark bulunmamaktadır. İki yöntem de yapısal risk minimizasyonu ve istatistiksel öğrenme teorisi ile çalışır. Çıktı olarak sınıflandırma bir çeşit etiket (label) verirken, regresyon bir sayı verir. Bu çalışmada, tahmin edilmesi istenen değer ilerleme hızı, yani sayısal bir değer olduğu için DVM'nin regresyon modeli kullanılmıştır. Bu model Destek Vektör Regresyonu (DVR) olarak adlandırılır. Yöntem, kullanılmak istenen veri setinin öğrenme (train) ve test olmak üzere iki alt veri setlerine bölünmesi ile uygulanır. Öğrenme veri seti kullanılarak, ilgili parametreler ve gözlemler arasındaki ilişki belirlenerek bir regresyon modeli oluşturulur. Daha sonra test veri seti, oluşturulan bu model üzerine uygulanarak hedef değer tahmin edilir. Bu çalışmada DVR'nin yaygın modellerinden biri olan Epsilon-duyarsız kayıp fonksiyonu ve nü kontrol parametreli model kullanılmıştır. Bu modelde, öğrenme veri setindeki her bir gözlem değerinden en fazla Epsilon kadar sapma yapacak ve mümkün olduğunca düz olacak şekilde bir fonksiyon bulunur. Diğer bir deyişle, Epsilon'dan küçük olan hatalar göz ardı edilir; fakat Epsilon'dan büyük sapmalar kabul edilmez. Belirlenen epsilon bandı civarında da gevşek değerlerin tolare edilebilirliğini belirleyen bir penaltı parametresi belirlenir. υ parametresi ise epsilon bandını kontrol edebilen kullanıcı tarafından belirlenen bir parametredir. Bu tez çalışmasında DVR yöntemi kullanılarak ilerleme hızı tahminleri BvY çalışmasındaki veri seti kullanımıyla gerçekleştirilmiştir. Veriler sekiz parametre kapsamında tanımlandığı için genel bir yaklaşım olarak parametre sayısının iki katı olan 16 veri, üç katı olan 24 veri ve tamamı girdi verisi olarak kullanılmıştır. Geri kalan veriler ise test seti olarak kullanılmıştır. Veri seçimi rastgele olabildiği için çok sayıda analiz kombinasyonu ortaya çıkmaktadır. Veri seçiminde tercih edilen yaklaşıma bağlı olarak DVR yönteminin uygulanması farklı durumlar ve senaryolar için incelenmiştir. Farklı yöntemler ile elde edilen sonuçlar, her bir senaryo için ait olduğu durum altında irdelenmiştir. Sonuçlarda en iyi tahmin yapan yöntemin seçilen veri setine bağlı olduğu görülmüştür. Öğrenme veri setinin az olduğu durumlarda ilerleme hızı tahmini yapmak için DVR'nin çoklu regresyon yerine alternatif olarak kullanılabileceği belirlenmiştir. Makine öğrenmesi yöntemlerinin en etkililerinden biri olan DVR, ilerleme hızı optimizasyonu için literatürde ilk kez bu tez çalışmasında kullanılmıştır. Böylelikle, DVR'nin ilerleme hızı optimizasyonu problemine genelleştirilmiş bir çözüm sunabileceğinin araştırılması gibi yeni araştırma alanı ortaya çıkmıştır.Drilling operations constitute the major part of the exploration costs. During operations, drill bits are the primary part needs to be changed frequently due to its quick wearing nature. In order to reduce the drilling cost, the optimum bit pulling time must be determined. To determine the optimum bit pulling time, either rate of penetration or the tooth wearing parameter must be estimated. The most common method that developed for estimating the optimum time for bit change is "Bourgoyne and Young" method. In this method, eight parameter coefficients are needed. To obtain these coefficients, thirty different data which can be taken from either different shale zones inside thirty different wells in a field or thirty different shale points from one well is needed. However, when there is not enough data taken from thirty different shale sections, the accuracy of "Bourgoyne and Young" method decreases. To construct the functional relationship with the data and parameter coefficients, a regression analysis must be performed. In this study, two kind of regression technique is used and the results are compared to each other. First technique is the multiple regression analysis, which is also used in "Bourgoyne and Young" method. This analysis applies least-squares-principled-regression to the data and calculates the parameter coefficients in order to estimate the target function. The second technique is one of different types of machine learning algorithms, called Support Vector Regression. In this technique, first, the data is divided into train and test datasets. Then, the regression model is constructed by using train datasets. At last, the model is applied to test datasets in order to predict the target values for the function. For the calculations, the selection of training and testing data sets are divided into cases with different scenarios. The results of different predictor methods for each scenario are compared with each other in the corresponding case. The results show the significant effect of data selection on the accuracy of penetration rate prediction. One of the most powerful methods in machine learning, Support Vector Regression, is used for rate of penetration optimization for the first time in the literature with this thesis study. Recent developments in hole cleaning technology in deviated well bores for geothermal and petroleum
This paper is looking on recent developments in hole cleaning technologies and how recent advancements can be used to aid efficient hole cleaning in deviated wells. Successful hole cleaning relies upon integrating optimum drilling fluid properties with the best drilling practices. The ability of the drilling fluid to transport the drilling cuttings to the are determined by several parameters (cutting density, mud weight, hole-size, hole-angle, rheology of fluid, cutting size, rate of penetration, drill pipe eccentricity, drill pipe rotation speed, phase of fluid, cutting transport ratio and cutting bed properties).
Efficient hole cleaning of deviated wells is important and difficult to perform efficiently, deviated wells normally uses drilling fluid with lower viscosity and gel building properties than in vertical section. Deviated wells are an important tool to either boost the return from existing fields or gaining access to new and formerly inaccessible formations. The increasing need for oil and gas have kept increasing with ever increasing energy output in the world, despite the world trying to swap to more renewable resources. Petroleum products such as coal, gas and oil still stand for over 80% of the energy production in the world. Increasing energy demands from the world exceeds the development within renewable technologies and gaining access to new formation and extracting most of the oil and gas in current formation will be paramount in giving people access to energy required to keep the world running. Percentage of world’s energy coming from renewable resources has increased and will hopefully keep increasing, but total energy demand especially from developing countries with increasing population and higher standard of living requires higher amount of energy than the countries are currently consuming with renewable being too expensive, inefficient, or lacking the required infrastructure for implementation. The paper is a compilation of recent developments and would hopefully give the reader insight in the processes most important efficient hole cleaning for deviated wells.
The topic of efficient hole cleaning is complex, and a lot of different parameters will be introduced to understand the role of new developments. Basic understanding of these parameters and their interplay with each other is required to understand to keep the innovation with respect to efficient hole cleaning and automating more of the process involved in hole cleaning while drilling in deviated wells.
The paper also uses the information from collected studies to write to a data code based on recent developments to aid in controlling the right rate of penetration (ROP) during drilling. No independent research was those in this paper and is based on the work of research and literature of others
