Modeling of Distance Learners’ Retention Using Mixed-Model on Non-Proportional Hazard
Universitas Terbuka is a public university in Indonesia that implements an open-distance education system. The quality and success of higher education in Indonesia are indicated by the gross enrolment rate (GER). Modelling student retention is one indicator of the value of the GER. The chances of distance learners’ retention in a certain period can be determined through survival analysis, namely the “Cox model” or “Cox proportional hazard model”. The limitations of the Cox model pose new problems in modelling that involve more than two types of covariates and the presence of random effects. The problem that arises is the non-proportional hazard. The cause of non-proportional hazard is time-dependent covariates, so that individual risk changes over time. Another reason is the presence of random effects, both observed and unobserved. In this model, there are two random effects, namely, the unobserved random effect and the observed random effect. Thus, the model is called the mixed effect model of non-proportional hazard. Based on the characteristics of the covariates observed, appropriate survival analysis for modelling distance learners’ retention is a mixed model on the non-proportional hazard. The covariates involved in very complex modelling include time-independent covariates, time-dependent covariates, and unobserved random effects. The results of the analysis with the mixed model on non-proportional hazard showed that the covariates that significantly affected the distance learner’s retention were: educational background, age, grade point average, marital status, scholarship, independent learning culture, number of credits taken, and number of courses taken each semester
The majority of algorithms used in the data analysis are designed according to the capacities of power and flexibility rather than for its simplicity and are too complex to use in the educational context. The objective of this paperis to present a literature review on the learning analytics in higher education: problems, limitations, techniques and tools used. The systematicliterature review methodology was used to answer three research questions on the basis of scientific publications. This paper concludes that it mustimplement, adapt or develop algorithms for the educational context and must be build tools for the analysis of educational data with intuitive interfaces and easy to use. The efficacy of learning analytics interventions in higher education: A systematic review
This is the author accepted manuscript. The final version is available from Wiley via the DOI in this record.Educational institutions are increasingly turning to learning analytics to identify and intervene with
students at risk of underperformance or discontinuation. However, the extent to which the current
evidence base supports this investment is currently unclear, and particularly so in relation to the
effectiveness of interventions based on predictive models. The aim of the present paper was to
conduct a systematic review and quality assessment of studies on the use of learning analytics in
higher education, focusing specifically on intervention studies. Search terms identified 689 articles,
but only 11 studies evaluated the effectiveness of interventions based on learning analytics. These
studies highlighted the potential of such interventions, but the general quality of the research was
moderate, and left several important questions unanswered. The key recommendation based on this
review is that more research into the implementation and evaluation of scientifically driven learning
analytics is needed to build a solid evidence base for the feasibility, effectiveness, and
generalizability of such interventions. This is particularly relevant when considering the increasing
tendency of educational institutions around the world to implement learning analytics interventions
with only little evidence of their effectiveness. The research reported in this paper was supported by the University of

On predicting academic performance with process mining in learning analytics
Purpose - The purpose of this paper is to propose a process mining approach to help in making early predictions to improve students’ learning experience in massive open online courses (MOOCs). It investigates the impact of various machine learning techniques in combination with process mining features to measure effectiveness of these techniques. Design/methodology/approach - Student’s data (e.g. assessment grades, demographic information) and weekly interaction data based on event logs (e.g. video lecture interaction, solution submission time, time spent weekly) have guided this design. This study evaluates four machine learning classification techniques used in the literature (logistic regression (LR), Naïve Bayes (NB), random forest (RF) and K-nearest neighbor) to monitor weekly progression of students’ performance and to predict their overall performance outcome. Two data sets – one, with traditional features and second, with features obtained from process conformance testing – have been used. Findings - The results show that techniques used in the study are able to make predictions on the performance of students. Overall accuracy (F1-score, area under curve) of machine learning techniques can be improved by integrating process mining features with standard features. Specifically, the use of LR and NB classifiers outperforms other techniques in a statistical significant way. Practical implications - Although MOOCs provide a platform for learning in highly scalable and flexible manner, they are prone to early dropout and low completion rate. This study outlines a data-driven approach to improve students’ learning experience and decrease the dropout rate. Social implications - Early predictions based on individual’s participation can help educators provide support to students who are struggling in the course. Originality/value - This study outlines the innovative use of process mining techniques in education data mining to help educators gather data-driven insight on student performances in the enrolled courses
The dropout rate, the failure of university students, appears to be a universal problem that concerns teachers, institutions, governments and international organizations. Dropout rates, when related to teaching and learning through digital systems (distance education), are even higher than in face-to-face formats. The goals of this work focus, firstly, on selecting the most outstanding causes that weaken the pedagogical dialogue (mediated educational dialogue) and, consequently, increase dropout rates, and secondly, on pointing out support and guidance actions that could promote quality pedagogical dialogues leading to success, higher satisfaction rates and, consequently, retention, persistence and academic commitment and, thus, reducing the number of student failures. We proceed to the study through a review of the most outstanding scientific literature to detect the main reasons that motivate distance students to drop out from their studies and a number of institutional and teaching actions that can help reduce those failure rates. The focus here is on the proposal of Mediated Educational Dialogue (García Aretio, 2014). When a student's dialogue with the institution, teachers, peers and resources breaks down, a feeling of discouragement, anxiety and frustration appears which, if not addressed, leads to dropout.

Dropout Prediction and Reduction in Distance Education Courses with the Learning Analytics Multitrail Approach
Distance Education courses are present in large number of educational institutions. Virtual Learning Environments development contributes to this wide adoption of Distance Education modality and allows new pedagogical methodologies. However, dropout rates observed in these courses are very expressive, both in public and private educational institutions. This paper presents a Learning Analytics system developed to deal with dropout problem in Distance Education courses on university-level education. Several complementary tools, allowing data visualization, dropout predictions, support to pedagogical actions and textual analysis, among others, are available in the system. The implementation of these tools is feasible due to the adoption of an approach called Multitrail to represent and manipulate data from several sources and formats. The obtained results from experiments carried out with courses in a Brazilian university show the dropout prediction with an average of 87% precision. A set of pedagogical actions concerning students among the higher probabilities of dropout was implemented and we observed average reduction of 11% in dropout rates

This thesis adopts a learning analytics approach and focuses on two online mathematics courses at the Universitat Oberta de Catalunya (UOC): Calculus and Statistics. Our findings suggest that final exam scores are related to taking quizzes, as well as to quiz scores. Specifically, we show that not taking or succeeding in the final exam can be predicted from students' scores on the first few quizzes of the academic year. A teaching intervention was designed and implemented to allow students to take any of the quizzes that they had not submitted before the original deadline. Analysing the effectiveness of this intervention, we have found that it improves students' chances of taking the final exam, and therefore reduces student drop-out in the Statistics course. This doctoral thesis has allowed us to conclude that, for online mathematics courses, being engaged throughout the course by taking quizzes with automatic correction and feedback helps students achieve their learning goals.
