An IoT Endpoint System-on-Chip for Secure and Energy-Efficient Near-Sensor Analytics
Near-sensor data analytics is a promising direction for IoT endpoints, as it
minimizes energy spent on communication and reduces network load - but it also
poses security concerns, as valuable data is stored or sent over the network at
various stages of the analytics pipeline. Using encryption to protect sensitive
data at the boundary of the on-chip analytics engine is a way to address data
security issues. To cope with the combined workload of analytics and encryption
in a tight power envelope, we propose Fulmine, a System-on-Chip based on a
tightly-coupled multi-core cluster augmented with specialized blocks for
compute-intensive data processing and encryption functions, supporting software
programmability for regular computing tasks. The Fulmine SoC, fabricated in
65nm technology, consumes less than 20mW on average at 0.8V achieving an
efficiency of up to 70pJ/B in encryption, 50pJ/px in convolution, or up to
25MIPS/mW in software. As a strong argument for real-life flexible application
of our platform, we show experimental results for three secure analytics use
cases: secure autonomous aerial surveillance with a state-of-the-art deep CNN
consuming 3.16pJ per equivalent RISC op; local CNN-based face detection with
secured remote recognition in 5.74pJ/op; and seizure detection with encrypted

A Construction Kit for Efficient Low Power Neural Network Accelerator Designs
Implementing embedded neural network processing at the edge requires
efficient hardware acceleration that couples high computational performance
with low power consumption. Driven by the rapid evolution of network
architectures and their algorithmic features, accelerator designs are
constantly updated and improved. To evaluate and compare hardware design
choices, designers can refer to a myriad of accelerator implementations in the
literature. Surveys provide an overview of these works but are often limited to
system-level and benchmark-specific performance metrics, making it difficult to
quantitatively compare the individual effect of each utilized optimization
technique. This complicates the evaluation of optimizations for new accelerator
designs, slowing-down the research progress. This work provides a survey of
neural network accelerator optimization approaches that have been used in
recent works and reports their individual effects on edge processing
performance. It presents the list of optimizations and their quantitative
effects as a construction kit, allowing to assess the design choices for each
building block separately. Reported optimizations range from up to 10'000x
memory savings to 33x energy reductions, providing chip designers an overview
of design choices for implementing efficient low power neural network
accelerators
Nn-X - a hardware accelerator for convolutional neural networks
Convolutional neural networks (ConvNets) are hierarchical models of the mammalian visual cortex. These models have been increasingly used in computer vision to perform object recognition and full scene understanding. ConvNets consist of multiple layers that contain groups of artificial neurons, which are mathematical approximations of biological neurons. A ConvNet can consist of millions of neurons and require billions of computations to produce one output. ^ Currently, giant server farms are used to process information in real time. These supercomputers require a large amount of power and a constant link to the end-user. Low powered embedded systems are not able to run convolutional neural networks in real time. Thus, using these systems on mobile platforms or on platforms where a connection to an off-site server is not guaranteed, is unfeasible. ^ In this work we present nn-X — a scalable hardware architecture capable of processing ConvNets in real time. We evaluate the performance and power consumption of the aforementioned architecture and compare it with systems typically used to process convolutional neural networks. Our system is prototyped on the Xilinx Zynq XC7Z045 device. On this device, we are able to achieve a peak performance of 227 GOPs/s, a measured performance of up to 200 GOPs/s while consuming less than 3 W of power. This translates to a performance per power improvement of up to 10 times that of conventional embedded systems and up to 25 times that of performance systems like desktops and GPUs
Energy-Efficient Neural Network Architectures
Emerging systems for artificial intelligence (AI) are expected to rely on deep neural networks (DNNs) to achieve high accuracy for a broad variety of applications, including computer vision, robotics, and speech recognition. Due to the rapid growth of network size and depth, however, DNNs typically result in high computational costs and introduce considerable power and performance overheads. Dedicated chip architectures that implement DNNs with high energy efficiency are essential for adding intelligence to interactive edge devices, enabling them to complete increasingly sophisticated tasks by extending battery lie. They are also vital for improving performance in cloud servers that support demanding AI computations.
This dissertation focuses on architectures and circuit technologies for designing energy-efficient neural network accelerators. First, a deep-learning processor is presented for achieving ultra-low power operation. Using a heterogeneous architecture that includes a low-power always-on front-end and a selectively-enabled high-performance back-end, the processor dynamically adjusts computational resources at runtime to support conditional execution in neural networks and meet performance targets with increased energy efficiency. Featuring a reconfigurable datapath and a memory architecture optimized for energy efficiency, the processor supports multilevel dynamic activation of neural network segments, performing object detection tasks with 5.3x lower energy consumption in comparison with a static execution baseline. Fabricated in 40nm CMOS, the processor test-chip dissipates 0.23mW at 5.3 fps. It demonstrates energy scalability up to 28.6 TOPS/W and can be configured to run a variety of workloads, including severely power-constrained ones such as always-on monitoring in mobile applications.
To further improve the energy efficiency of the proposed heterogeneous architecture, a new charge-recovery logic family, called zero-short-circuit current (ZSCC) logic, is proposed to decrease the power consumption of the always-on front-end. By relying on dedicated circuit topologies and a four-phase clocking scheme, ZSCC operates with significantly reduced short-circuit currents, realizing order-of-magnitude power savings at relatively low clock frequencies (in the order of a few MHz). The efficiency and applicability of ZSCC is demonstrated through an ANSI S1.11 1/3 octave filter bank chip for binaural hearing aids with two microphones per ear. Fabricated in a 65nm CMOS process, this charge-recovery chip consumes 13.8µW with a 1.75MHz clock frequency, achieving 9.7x power reduction per input in comparison with a 40nm monophonic single-input chip that represents the published state of the art. The ability of ZSCC to further increase the energy efficiency of the heterogeneous neural network architecture is demonstrated through the design and evaluation of a ZSCC-based front-end. A Survey on Design Methodologies for Accelerating Deep Learning on Heterogeneous Architectures
In recent years, the field of Deep Learning has seen many disruptive and
impactful advancements. Given the increasing complexity of deep neural
networks, the need for efficient hardware accelerators has become more and more
pressing to design heterogeneous HPC platforms. The design of Deep Learning
accelerators requires a multidisciplinary approach, combining expertise from
several areas, spanning from computer architecture to approximate computing,
computational models, and machine learning algorithms. Several methodologies
and tools have been proposed to design accelerators for Deep Learning,
including hardware-software co-design approaches, high-level synthesis methods,
specific customized compilers, and methodologies for design space exploration,
modeling, and simulation. These methodologies aim to maximize the exploitable
parallelism and minimize data movement to achieve high performance and energy
efficiency. This survey provides a holistic review of the most influential
design methodologies and EDA tools proposed in recent years to implement Deep
Learning accelerators, offering the reader a wide perspective in this rapidly
evolving field. In particular, this work complements the previous survey
proposed by the same authors in [203], which focuses on Deep Learning hardware
accelerators for heterogeneous HPC platforms

Embedded Machine Learning: Emphasis on Hardware Accelerators and Approximate Computing for Tactile Data Processing
Machine Learning (ML) a subset of Artificial Intelligence (AI) is driving the industrial
and technological revolution of the present and future. We envision a world with smart
devices that are able to mimic human behavior (sense, process, and act) and perform
tasks that at one time we thought could only be carried out by humans. The vision
is to achieve such a level of intelligence with affordable, power-efficient, and fast hardware
platforms. However, embedding machine learning algorithms in many application domains
such as the internet of things (IoT), prostheses, robotics, and wearable devices is an ongoing
challenge. A challenge that is controlled by the computational complexity of ML algorithms,
the performance/availability of hardware platforms, and the application\u2019s budget (power
constraint, real-time operation, etc.). In this dissertation, we focus on the design and
implementation of efficient ML algorithms to handle the aforementioned challenges. First, we
apply Approximate Computing Techniques (ACTs) to reduce the computational complexity of
ML algorithms. Then, we design custom Hardware Accelerators to improve the performance
of the implementation within a specified budget. Finally, a tactile data processing application
is adopted for the validation of the proposed exact and approximate embedded machine
learning accelerators.
The dissertation starts with the introduction of the various ML algorithms used for
tactile data processing. These algorithms are assessed in terms of their computational
complexity and the available hardware platforms which could be used for implementation.
Afterward, a survey on the existing approximate computing techniques and hardware
accelerators design methodologies is presented. Based on the findings of the survey, an
approach for applying algorithmic-level ACTs on machine learning algorithms is provided.
Then three novel hardware accelerators are proposed: (1) k-Nearest Neighbor (kNN) based
on a selection-based sorter, (2) Tensorial Support Vector Machine (TSVM) based on Shallow
Neural Networks, and (3) Hybrid Precision Binary Convolution Neural Network (BCNN).
The three accelerators offer a real-time classification with monumental reductions in the
hardware resources and power consumption compared to existing implementations targeting
the same tactile data processing application on FPGA. Moreover, the approximate accelerators
maintain a high classification accuracy with a loss of at most 5%
