An evaluation of the pedestrian classification in a multi-domain multi-modality setup
The objective of this article is to study the problem of pedestrian classification across different light spectrum domains (visible and far-infrared (FIR)) and modalities (intensity, depth and motion). In recent years, there has been a number of approaches for classifying and detecting pedestrians in both FIR and visible images, but the methods are difficult to compare, because either the datasets are not publicly available or they do not offer a comparison between the two domains. Our two primary contributions are the following: (1) we propose a public dataset, named RIFIR , containing both FIR and visible images collected in an urban environment from a moving vehicle during daytime; and (2) we compare the state-of-the-art features in a multi-modality setup: intensity, depth and flow, in far-infrared over visible domains. The experiments show that features families, intensity self-similarity (ISS), local binary patterns (LBP), local gradient patterns (LGP) and histogram of oriented gradients (HOG), computed from FIR and visible domains are highly complementary, but their relative performance varies across different modalities. In our experiments, the FIR domain has proven superior to the visible one for the task of pedestrian classification, but the overall best results are obtained by a multi-domain multi-modality multi-feature fusion
A framework for automated landmark recognition in community contributed image corpora
Any large library of information requires efficient ways to organise it and methods that allow people to access information efficiently and collections of digital images are no exception. Automatically creating high-level semantic tags based on image content is difficult, if not impossible to achieve accurately. In this thesis a framework is presented that allows for the automatic creation of rich and accurate tags for images with landmarks as the main object. This framework uses state of the art computer vision techniques fused with the wide range of contextual information that is available with community contributed imagery.
Images are organised into clusters based on image content and spatial data associated with each image. Based on these clusters different types of classifiers are* trained to recognise landmarks contained within the images in each cluster. A novel hybrid approach is proposed combining these classifiers with an hierarchical matching approach to allow near real-time classification and captioning of images containing landmarks

Evaluating visually grounded language capabilities using microworlds
Deep learning has had a transformative impact on computer vision and natural language processing. As a result, recent years have seen the introduction of more ambitious holistic understanding tasks, comprising a broad set of reasoning abilities. Datasets in this context typically act not just as application-focused benchmark, but also as basis to examine higher-level model capabilities. This thesis argues that emerging issues related to dataset quality, experimental practice and learned model behaviour are symptoms of the inappropriate use of benchmark datasets for capability-focused assessment. To address this deficiency, a new evaluation methodology is proposed here, which specifically targets in-depth investigation of model performance based on configurable data simulators. This focus on analysing system behaviour is complementary to the use of monolithic datasets as application-focused comparative benchmarks.
Visual question answering is an example of a modern holistic understanding task, unifying a range of abilities around visually grounded language understanding in a single problem statement. It has also been an early example for which some of the aforementioned issues were identified. To illustrate the new evaluation approach, this thesis introduces ShapeWorld, a diagnostic data generation framework. Its design is guided by the goal to provide a configurable and extensible testbed for the domain of visually grounded language understanding. Based on ShapeWorld data, the strengths and weaknesses of various state-of-the-art visual question answering models are analysed and compared in detail, with respect to their ability to correctly handle statements involving, for instance, spatial relations or numbers. Finally, three case studies illustrate the versatility of this approach and the ShapeWorld generation framework: an investigation of multi-task and curriculum learning, a replication of a psycholinguistic study for deep learning models, and an exploration of a new approach to assess generative tasks like image captioning.Qualcomm Award Premium Research Studentship,

From pixels to people : recovering location, shape and pose of humans in images
Humans are at the centre of a significant amount of research in computer vision. Endowing machines with the ability to perceive people from visual data is an immense scientific challenge with a high degree of direct practical relevance. Success in automatic perception can be measured at different levels of abstraction, and this will depend on which intelligent behaviour we are trying to replicate: the ability to localise persons in an image or in the environment, understanding how persons are moving at the skeleton and at the surface level, interpreting their interactions with the environment including with other people, and perhaps even anticipating future actions. In this thesis we tackle different sub-problems of the broad research area referred to as "looking at people", aiming to perceive humans in images at different levels of granularity. We start with bounding box-level pedestrian detection: We present a retrospective analysis of methods published in the decade preceding our work, identifying various strands of research that have advanced the state of the art. With quantitative exper- iments, we demonstrate the critical role of developing better feature representations and having the right training distribution. We then contribute two methods based on the insights derived from our analysis: one that combines the strongest aspects of past detectors and another that focuses purely on learning representations. The latter method outperforms more complicated approaches, especially those based on hand- crafted features. We conclude our work on pedestrian detection with a forward-looking analysis that maps out potential avenues for future research. We then turn to pixel-level methods: Perceiving humans requires us to both separate them precisely from the background and identify their surroundings. To this end, we introduce Cityscapes, a large-scale dataset for street scene understanding. This has since established itself as a go-to benchmark for segmentation and detection. We additionally develop methods that relax the requirement for expensive pixel-level annotations, focusing on the task of boundary detection, i.e. identifying the outlines of relevant objects and surfaces. Next, we make the jump from pixels to 3D surfaces, from localising and labelling to fine-grained spatial understanding. We contribute a method for recovering 3D human shape and pose, which marries the advantages of learning-based and model- based approaches. We conclude the thesis with a detailed discussion of benchmarking practices in computer vision. Among other things, we argue that the design of future datasets should be driven by the general goal of combinatorial robustness besides task-specific considerations.Der Mensch steht im Zentrum vieler Forschungsanstrengungen im Bereich des maschinellen Sehens. Es ist eine immense wissenschaftliche Herausforderung mit hohem unmittelbarem Praxisbezug, Maschinen mit der FĂ€higkeit auszustatten, Menschen auf der Grundlage von visuellen Daten wahrzunehmen. Die automatische Wahrnehmung kann auf verschiedenen Abstraktionsebenen erfolgen. Dies hĂ€ngt davon ab, welches intelligente Verhalten wir nachbilden wollen: die FĂ€higkeit, Personen auf der BildflĂ€che oder im 3D-Raum zu lokalisieren, die Bewegungen von Körperteilen und KörperoberflĂ€chen zu erfassen, Interaktionen einer Person mit ihrer Umgebung einschlieĂlich mit anderen Menschen zu deuten, und vielleicht sogar zukĂŒnftige Handlungen zu antizipieren. In dieser Arbeit beschĂ€ftigen wir uns mit verschiedenen Teilproblemen die dem breiten Forschungsgebiet "Betrachten von Menschen" gehören. Beginnend mit der FuĂgĂ€ngererkennung prĂ€sentieren wir eine Analyse von Methoden, die im Jahrzehnt vor unserem Ausgangspunkt veröffentlicht wurden, und identifizieren dabei verschiedene ForschungsstrĂ€nge, die den Stand der Technik vorangetrieben haben. Unsere quantitativen Experimente zeigen die entscheidende Rolle sowohl der Entwicklung besserer Bildmerkmale als auch der Trainingsdatenverteilung. AnschlieĂend tragen wir zwei Methoden bei, die auf den Erkenntnissen unserer Analyse basieren: eine Methode, die die stĂ€rksten Aspekte vergangener Detektoren kombiniert, eine andere, die sich im Wesentlichen auf das Lernen von Bildmerkmalen konzentriert. Letztere ĂŒbertrifft kompliziertere Methoden, insbesondere solche, die auf handgefertigten Bildmerkmalen basieren. Wir schlieĂen unsere Arbeit zur FuĂgĂ€ngererkennung mit einer vorausschauenden Analyse ab, die mögliche Wege fĂŒr die zukĂŒnftige Forschung aufzeigt. AnschlieĂend wenden wir uns Methoden zu, die Entscheidungen auf Pixelebene betreffen. Um Menschen wahrzunehmen, mĂŒssen wir diese sowohl praezise vom Hintergrund trennen als auch ihre Umgebung verstehen. Zu diesem Zweck fĂŒhren wir Cityscapes ein, einen umfangreichen Datensatz zum VerstĂ€ndnis von StraĂenszenen. Dieser hat sich seitdem als Standardbenchmark fĂŒr Segmentierung und Erkennung etabliert. DarĂŒber hinaus entwickeln wir Methoden, die die Notwendigkeit teurer Annotationen auf Pixelebene reduzieren. Wir konzentrieren uns hierbei auf die Aufgabe der Umgrenzungserkennung, d. h. das Erkennen der Umrisse relevanter Objekte und OberflĂ€chen. Als nĂ€chstes machen wir den Sprung von Pixeln zu 3D-OberflĂ€chen, vom Lokalisieren und Beschriften zum prĂ€zisen rĂ€umlichen VerstĂ€ndnis. Wir tragen eine Methode zur SchĂ€tzung der 3D-KörperoberflĂ€che sowie der 3D-Körperpose bei, die die Vorteile von lernbasierten und modellbasierten AnsĂ€tzen vereint. Wir schlieĂen die Arbeit mit einer ausfĂŒhrlichen Diskussion von Evaluationspraktiken im maschinellen Sehen ab. Unter anderem argumentieren wir, dass der Entwurf zukĂŒnftiger DatensĂ€tze neben aufgabenspezifischen Ăberlegungen vom allgemeinen Ziel der kombinatorischen Robustheit bestimmt werden sollte

MAC-REALM: A video content feature extraction and modelling framework
This thesis was submitted for the degree of Doctor of Philosophy and awarded by Brunel University.A consequence of the âdata delugeâ is the exponential increase in digital video footage, while the ability to find relevant video clips diminishes. Traditional text based search engines are no longer optimal for searching, as they cannot provide a granular search of the content inside video footage. To be able to search the video in a content based manner, the content features of the video need to be extracted and modelled into a content model, which can then act as a searchable proxy for the video content. This thesis focuses on the extraction of syntactic and semantic content features and content modelling, using machine driven processes, with either little or no user interaction. Our abstract framework design extracts syntactic and semantic content features and compiles them into an integrated content model. The framework integrates a four plane strategy that consists of a pre-processing plane that removes redundant data and filters the media to improve the feature extraction properties of the media; a syntactic feature extraction plane that extracts low level syntactic feature and mid-level syntactic features that have semantic attributes; a semantic relationship analysis and linkage plane, where the spatial and temporal relationships of all the content features are defined, and finally a content modelling stage where the syntactic and semantic content features are integrated into a content model. Each of the four planes can be split into three layers namely, the content layer, where the content to be processed is stored; the application layer, where the content is converted into content descriptions, and the MPEG-7 layer, where content descriptions are serialised. Using MPEG-7 standards to produce the content model will provide wide-ranging interoperability, while facilitating granular multi-content type searches. The framework is aiming to âbridgeâ the semantic gap, by integrating the syntactic and semantic content features from extraction through to modelling. The design of the framework has been implemented into a prototype called MAC-REALM, which has been tested and evaluated for its effectiveness to extract and model content features. Conclusions are drawn about the research output as a whole and whether they have met the objectives. Finally, future work is presented on how concept detection and crowd sourcing can be used with MAC-REALM
Human-Centered Content-Based Image Retrieval
Retrieval of images that lack a (suitable) annotations cannot be achieved through (traditional) Information Retrieval (IR) techniques. Access through such collections can be achieved through the application of computer vision techniques on the IR problem, which is baptized Content-Based Image Retrieval (CBIR). In contrast with most purely technological approaches, the thesis Human-Centered Content-Based Image Retrieval approaches the problem from a human/user centered perspective. Psychophysical experiments were conducted in which people were asked to categorize colors. The data gathered from these experiments was fed to a Fast Exact Euclidean Distance (FEED) transform (Schouten & Van den Broek, 2004), which enabled the segmentation of color space based on human perception (Van den Broek et al., 2008). This unique color space segementation was exploited for texture analysis and image segmentation, and subsequently for full-featured CBIR. In addition, a unique CBIR-benchmark was developed (Van den Broek et al., 2004, 2005). This benchmark was used to explore what and how several parameters (e.g., color and distance measures) of the CBIR process influence retrieval results. In contrast with other research, users judgements were assigned as metric. Self-supervised learning for transferable representations
Machine learning has undeniably achieved remarkable advances thanks to large labelled datasets and supervised learning. However, this progress is constrained by the labour-intensive annotation process. It is not feasible to generate extensive labelled datasets for every problem we aim to address. Consequently, there has been a notable shift in recent times toward approaches that solely leverage raw data. Among these, self-supervised learning has emerged as a particularly powerful approach, offering scalability to massive datasets and showcasing considerable potential for effective knowledge transfer. This thesis investigates self-supervised representation learning with a strong focus on computer vision applications. We provide a comprehensive survey of self-supervised methods across various modalities, introducing a taxonomy that categorises them into four distinct families while also highlighting practical considerations for real-world implementation. Our focus thenceforth is on the computer vision modality, where we perform a comprehensive benchmark evaluation of state-of-the-art self supervised models against many diverse downstream transfer tasks. Our findings reveal that self-supervised models often outperform supervised learning across a spectrum of tasks, albeit with correlations weakening as tasks transition beyond classification, particularly for datasets with distribution shifts. Digging deeper, we investigate the influence of data augmentation on the transferability of contrastive learners, uncovering a trade-off between spatial and appearance-based invariances that generalise to real-world transformations. This begins to explain the differing empirical performances achieved by self-supervised learners on different downstream tasks, and it showcases the advantages of specialised representations produced with tailored augmentation. Finally, we introduce a novel self-supervised pre-training algorithm for object detection, aligning pre-training with downstream architecture and objectives, leading to reduced localisation errors and improved label efficiency. In conclusion, this thesis contributes a comprehensive understanding of self-supervised representation learning and its role in enabling effective transfer across computer vision tasks
