    Automatic Parallelization of Affine Loops using Dependence and Cache analysis in a Binary Rewriter

    Today, nearly all general-purpose computers are parallel, but nearly all software running on them is serial. Bridging this disconnect by manually rewriting source code in parallel is prohibitively expensive. Automatic parallelization technology is therefore an attractive alternative. We present a method to perform automatic parallelization in a binary rewriter. The input to the binary rewriter is the serial binary executable program and the output is a parallel binary executable. The advantages of parallelization in a binary rewriter versus a compiler include (i) compatibility with all compilers and languages; (ii) high economic feasibility from avoiding repeated compiler implementation; (iii) applicability to legacy binaries; and (iv) applicability to assembly-language programs. Adapting existing parallelizing compiler methods that work on source code to work on binary programs instead is a significant challenge. This is primarily because symbolic and array index information used in existing compiler parallelizers is not available in a binary. We show how to adapt existing parallelization methods to achieve equivalent parallelization from a binary without such information. We have also designed a affine cache reuse model that works inside a binary rewriter building on the parallelization techniques. It quantifies cache reuse in terms of the number of cache lines that will be required when a loop dimension is considered for the innermost position in a loop nest. This cache metric can be used to reason about affine code that results when affine code is transformed using affine transformations. Hence, it can be used to evaluate candidate transformation sequences to improve run-time directly from a binary. Results using our x86 binary rewriter called SecondWrite on a suite of dense- matrix regular programs from Polybench suite of benchmarks shows an geomean speedup of 6.81X from binary and 8.9X from source with 8 threads compared to the input serial binary on a x86 Xeon E5530 machine; and 8.31X from binary and 9.86X from source with 24 threads compared to the input serial binary on a x86 E7450 machine. Such regular loops are an important component of scientific and multi- media workloads, and are even present to a limited extent in otherwise non-regular programs. Further in this thesis we present a novel algorithm that enhances the past techniques significantly for loops with unknown loop bounds by guessing the loop bounds using only the memory expressions present in a loop. It then inserts run-time checks to see if these guesses were indeed correct and if correct executes the parallel version of the loop, else the serial version executes. These techniques are applied to the large affine benchmarks in SPEC2006 and OMP2001 and unlike previous methods the speedups from binary are as good as from source. We also present results on the number of loops parallelized directly from a binary with and without this algorithm. Among the 8 affine benchmarks among these suites, the best existing binary parallelization method achieves an geo-mean speedup of 1.33X, whereas our method achieves a speedup of 2.96X. This is close to the speedup from source code of 2.8X

    APOLLO: Automatic speculative POLyhedral Loop Optimizer

Apollo applies polyhedral optimizations on-the-fly to loop nests, whose control flow and memory access patterns cannot be determined at compile-time. In contrast to existing tools, Apollo can handle any kind of loop nest, whose memory accesses can be performed through pointers and in-directions. At runtime, Apollo builds a predictive polyhedral model, which is used for speculative optimization including parallelization. Being a dynamic system, Apollo can even apply the polyhedral model to nonlinear loops. This paper describes Apollo from the perspective of a user, as well as some of its main contributions and mechanisms, including the just-in-time polyhedral compilation, that significantly extends the scope of polyhedral techniques

    Un framework pour l'exécution efficace d'applications sur GPU et CPU+GPU

    Technological limitations faced by the semi-conductor manufacturers in the early 2000's restricted the increase in performance of the sequential computation units. Nowadays, the trend is to increase the number of processor cores per socket and to progressively use the GPU cards for highly parallel computations. Complexity of the recent architectures makes it difficult to statically predict the performance of a program. We describe a reliable and accurate parallel loop nests execution time prediction method on GPUs based on three stages: static code generation, offline profiling, and online prediction. In addition, we present two techniques to fully exploit the computing resources at disposal on a system. The first technique consists in jointly using CPU and GPU for executing a code. In order to achieve higher performance, it is mandatory to consider load balance, in particular by predicting execution time. The runtime uses the profiling results and the scheduler computes the execution times and adjusts the load distributed to the processors. The second technique, puts CPU and GPU in a competition: instances of the considered code are simultaneously executed on CPU and GPU.     Python Programmers Have GPUs Too: Automatic Python Loop Parallelization with Staged Dependence Analysis

    Python is a popular language for end-user software development in many application domains. End-users want to harness parallel compute resources effectively, by exploiting commodity manycore technology including GPUs. However, existing approaches to parallelism in Python are esoteric, and generally seem too complex for the typical end-user developer. We argue that implicit, or automatic, parallelization is the best way to deliver the benefits of manycore to end-users, since it avoids domain-specific languages, specialist libraries, complex annotations or restrictive language subsets. Auto-parallelization fits the Python philosophy, provides effective performance, and is convenient for non-expert developers. Despite being a dynamic language, we show that Python is a suitable target for auto-parallelization. In an empirical study of 3000+ open-source Python notebooks, we demonstrate that typical loop behaviour ‘in the wild’ is amenable to auto-parallelization. We show that staging the dependence analysis is an effective way to maximize performance. We apply classical dependence analysis techniques, then leverage the Python runtime’s rich introspection capabilities to resolve additional loop bounds and variable types in a just-in-time manner. The parallel loop nest code is then converted to CUDA kernels for GPU execution. We achieve orders of magnitude speedup over baseline interpreted execution and some speedup (up to 50x, although not consistently) over CPU JIT-compiled execution, across 12 loop-intensive standard benchmarks

    Polly's Polyhedral Scheduling in the Presence of Reductions

    The polyhedral model provides a powerful mathematical abstraction to enable effective optimization of loop nests with respect to a given optimization goal, e.g., exploiting parallelism. Unexploited reduction properties are a frequent reason for polyhedral optimizers to assume parallelism prohibiting dependences. To our knowledge, no polyhedral loop optimizer available in any production compiler provides support for reductions. In this paper, we show that leveraging the parallelism of reductions can lead to a significant performance increase. We give a precise, dependence based, definition of reductions and discuss ways to extend polyhedral optimization to exploit the associativity and commutativity of reduction computations. We have implemented a reduction-enabled scheduling approach in the Polly polyhedral optimizer and evaluate it on the standard Polybench 3.2 benchmark suite. We were able to detect and model all 52 arithmetic reductions and achieve speedups up to 2.21×\times on a quad core machine by exploiting the multidimensional reduction in the BiCG benchmark.Comment: Presented at the IMPACT15 worksho

    Structured parallelism discovery with hybrid static-dynamic analysis and evaluation technique

    Parallel computer architectures have dominated the computing landscape for the past two decades; a trend that is only expected to continue and intensify, with increasing specialization and heterogeneity. This creates huge pressure across the software stack to produce programming languages, libraries, frameworks and tools which will efficiently exploit the capabilities of parallel computers, not only for new software, but also revitalizing existing sequential code. Automatic parallelization, despite decades of research, has had limited success in transforming sequential software to take advantage of efficient parallel execution. This thesis investigates three approaches that use commutativity analysis as the enabler for parallelization. This has the potential to overcome limitations of traditional techniques. We introduce the concept of liveness-based commutativity for sequential loops. We examine the use of a practical analysis utilizing liveness-based commutativity in a symbolic execution framework. Symbolic execution represents input values as groups of constraints, consequently deriving the output as a function of the input and enabling the identification of further program properties. We employ this feature to develop an analysis and discern commutativity properties between loop iterations. We study the application of this approach on loops taken from real-world programs in the OLDEN and NAS Parallel Benchmark (NPB) suites, and identify its limitations and related overheads. Informed by these findings, we develop Dynamic Commutativity Analysis (DCA), a new technique that leverages profiling information from program execution with specific input sets. Using profiling information, we track liveness information and detect loop commutativity by examining the code’s live-out values. We evaluate DCA against almost 1400 loops of the NPB suite, discovering 86% of them as parallelizable. Comparing our results against dependence-based methods, we match the detection efficacy of two dynamic and outperform three static approaches, respectively. Additionally, DCA is able to automatically detect parallelism in loops which iterate over Pointer-Linked Data Structures (PLDSs), taken from wide range of benchmarks used in the literature, where all other techniques we considered failed. Parallelizing the discovered loops, our methodology achieves an average speedup of 3.6× across NPB (and up to 55×) and up to 36.9× for the PLDS-based loops on a 72-core host. We also demonstrate that our methodology, despite relying on specific input values for profiling each program, is able to correctly identify parallelism that is valid for all potential input sets. Lastly, we develop a methodology to utilize liveness-based commutativity, as implemented in DCA, to detect latent loop parallelism in the shape of patterns. Our approach applies a series of transformations which subsequently enable multiple applications of DCA over the generated multi-loop code section and match its loop commutativity outcomes against the expected criteria for each pattern. Applying our methodology on sets of sequential loops, we are able to identify well-known parallel patterns (i.e., maps, reduction and scans). This extends the scope of parallelism detection to loops, such as those performing scan operations, which cannot be determined as parallelizable by simply evaluating liveness-based commutativity conditions on their original form

    AUTOMATING DATA-LAYOUT DECISIONS IN DOMAIN-SPECIFIC LANGUAGES

    A long-standing challenge in High-Performance Computing (HPC) is the simultaneous achievement of programmer productivity and hardware computational efficiency. The challenge has been exacerbated by the onset of multi- and many-core CPUs and accelerators. Only a few expert programmers have been able to hand-code domain-specific data transformations and vectorization schemes needed to extract the best possible performance on such architectures. In this research, we examined the possibility of automating these methods by developing a Domain-Specific Language (DSL) framework. Our DSL approach extends C++14 by embedding into it a high-level data-parallel array language, and by using a domain-specific compiler to compile to hybrid-parallel code. We also implemented an array index-space transformation algebra within this high-level array language to manipulate array data-layouts and data-distributions. The compiler introduces a novel method for SIMD auto-vectorization based on array data-layouts. Our new auto-vectorization technique is shown to outperform the default auto-vectorization strategy by up to 40% for stencil computations. The compiler also automates distributed data movement with overlapping of local compute with remote data movement using polyhedral integer set analysis. Along with these main innovations, we developed a new technique using C++ template metaprogramming for developing embedded DSLs using C++. We also proposed a domain-specific compiler intermediate representation that simplifies data flow analysis of abstract DSL constructs. We evaluated our framework by constructing a DSL for the HPC grand-challenge domain of lattice quantum chromodynamics. Our DSL yielded performance gains of up to twice the flop rate over existing production C code for selected kernels. This gain in performance was obtained while using less than one-tenth the lines of code. The performance of this DSL was also competitive with the best hand-optimized and hand-vectorized code, and is an order of magnitude better than existing production DSLs.Doctor of Philosoph

    Using Decision Tree Voting to Select a Polyhedral Model Loop Transformation

    Algorithms in fields like image manipulation, sound and signal processing, and statistics frequently employ tight loops. These loops are computationally intensive and CPU-bound, making their performance highly dependent on efficient utilization of the CPU pipeline and memory bus. Recent years have seen CPU pipelines becoming more and more complicated, with features such as branch prediction and speculative execution. At the same time, clock speeds have stopped their prior exponential growth rate due to heat dissipation issues, and multiple cores have become prevalent. These developments have made it more difficult for developers to reason about how their code executes on the CPU, which in turn makes it difficult to write performant code. An automated method to take code and optimize it for most efficient execution would, therefore, be desirable. The Polyhedral Model allows the generation of alternative transformations for a loop nest that are semantically equivalent to the original. The transformations vary the degree of loop tiling, loop fusion, loop unrolling, parallelism, and vectorization. However, selecting the transformation that would most efficiently utilize the architecture remains challenging. Previous work utilizes regression models to select a transformation, using as features hardware performance counter values collected during a sample run of the program being optimized. Due to inaccuracies in the resulting regression model, the transformation selected by the model as the best transformation often yields unsatisfactory performance. As a result, previous work resorts to using a five-shot technique, which entails running the top five transformations suggested by the model and selecting the best one based on their actual runtime. However, for long-running benchmarks, five runs may be take an excessive amount of time. I present a variation on the previous approach which does not need to resort to the five-shot selection process to achieve performance comparable to the best five-shot results reported in previous work. With the transformations in the search space ranked in reverse runtime order, the transformation selected by my classifier is, on average, in the 86th percentile. There are several key contributing factors to the performance improvements attained by my method: formulating the problem as a classification problem rather than a regression problem, using static features in addition to dynamic performance counter features, performing feature selection, and using ensemble methods to boost the performance of the classifier. Decision trees are constructed from pairs of features (performance counters and structural features than can be determined statically from the source code). The trees are then evaluated according to the number of benchmarks for which they select a transformation that performs better than two baseline variants, the original program and the expected runtime if a randomly selected transformation were applied.     Discovery of Potential Parallelism in Sequential Programs

    In the era of multicore processors, the responsibility for performance gains has been shifted onto software developers. Once improvements of the sequential algorithm have been exhausted, software-managed parallelism is the only option left. However, writing parallel code is still difficult, especially when parallelizing sequential code written by someone else. A key task in this process is the identification of suitable parallelization targets in the source code. Parallelism discovery tools help developers to find such targets automatically. Unfortunately, tools that identify parallelism during compilation are usually conservative due to the lack of runtime information, and tools relying on runtime information primarily suffer from high overhead in terms of both time and memory. This dissertation presents a generic framework for parallelism discovery based on dynamic program analysis, supporting various types of parallelism while incurring practically affordable overhead. The framework contains two main components: an efficient data-dependence profiler and a set of parallelism discovery algorithms based on a language-independent concept called Computational Unit. The data-dependence profiler serves as the foundation of the parallelism discovery framework. Traditional dependence profiling approaches introduce a tremendous amount of time and memory overhead. To lower the overhead, current methods limit their scope to the subset of the dependence information needed for the analysis they have been created for, sacrificing generality and discouraging reuse. In contrast, the profiler shown in this thesis addresses the problem via signature-based memory management and a lock-free parallel design. It produces detailed dependences not only for sequential but also for multi-threaded code without causing prohibitive overhead, allowing it to serve as a generic base for various program analysis techniques. Computational Units (CUs) provide a language-independent foundation for parallelism discovery. CUs are computations that follow the read-compute-write pattern. Unlike other concepts, they are not restricted to predefined language constructs. A program is represented as a CU graph, in which vertexes are CUs and edges are data dependences. This allows parallelism to be detected that spreads across multiple language constructs, taking code refactoring into consideration. The parallelism discovery algorithms cover both loop and task parallelism. Results of our experiments show that 1) the efficient data-dependence profiler has a very competitive average slowdown of around 80× with accuracy higher than 99.6%; 2) the framework discovers parallelism with high accuracy, identifying 92.5% of the parallel loops in NAS benchmarks; 3) when parallelizing well-known open-source software following the outputs of the framework, reasonable speedups are obtained. Finally, use cases beyond parallelism discovery are briefly demonstrated to show the generality of the framework
