Interstellar: Using Halide's Scheduling Language to Analyze DNN Accelerators
We show that DNN accelerator micro-architectures and their program mappings
represent specific choices of loop order and hardware parallelism for computing
the seven nested loops of DNNs, which enables us to create a formal taxonomy of
all existing dense DNN accelerators. Surprisingly, the loop transformations
needed to create these hardware variants can be precisely and concisely
represented by Halide's scheduling language. By modifying the Halide compiler
to generate hardware, we create a system that can fairly compare these prior
accelerators. As long as proper loop blocking schemes are used, and the
hardware can support mapping replicated loops, many different hardware
dataflows yield similar energy efficiency with good performance. This is
because the loop blocking can ensure that most data references stay on-chip
with good locality and the processing units have high resource utilization. How
resources are allocated, especially in the memory system, has a large impact on
energy and performance. By optimizing hardware resource allocation while
keeping throughput constant, we achieve up to 4.2X energy improvement for
Convolutional Neural Networks (CNNs), 1.6X and 1.8X improvement for Long
Short-Term Memories (LSTMs) and multi-layer perceptrons (MLPs), respectively.Comment: Published as a conference paper at ASPLOS 202
Performance Implications of NoCs on 3D-Stacked Memories: Insights from the Hybrid Memory Cube
Memories that exploit three-dimensional (3D)-stacking technology, which
integrate memory and logic dies in a single stack, are becoming popular. These
memories, such as Hybrid Memory Cube (HMC), utilize a network-on-chip (NoC)
design for connecting their internal structural organizations. This novel usage
of NoC, in addition to aiding processing-in-memory capabilities, enables
numerous benefits such as high bandwidth and memory-level parallelism. However,
the implications of NoCs on the characteristics of 3D-stacked memories in terms
of memory access latency and bandwidth have not been fully explored. This paper
addresses this knowledge gap by (i) characterizing an HMC prototype on the
AC-510 accelerator board and revealing its access latency behaviors, and (ii)
by investigating the implications of such behaviors on system and software
designs
GME: GPU-based Microarchitectural Extensions to Accelerate Homomorphic Encryption
Fully Homomorphic Encryption (FHE) enables the processing of encrypted data
without decrypting it. FHE has garnered significant attention over the past
decade as it supports secure outsourcing of data processing to remote cloud
services. Despite its promise of strong data privacy and security guarantees,
FHE introduces a slowdown of up to five orders of magnitude as compared to the
same computation using plaintext data. This overhead is presently a major
barrier to the commercial adoption of FHE.
In this work, we leverage GPUs to accelerate FHE, capitalizing on a
well-established GPU ecosystem available in the cloud. We propose GME, which
combines three key microarchitectural extensions along with a compile-time
optimization to the current AMD CDNA GPU architecture. First, GME integrates a
lightweight on-chip compute unit (CU)-side hierarchical interconnect to retain
ciphertext in cache across FHE kernels, thus eliminating redundant memory
transactions. Second, to tackle compute bottlenecks, GME introduces special
MOD-units that provide native custom hardware support for modular reduction
operations, one of the most commonly executed sets of operations in FHE. Third,
by integrating the MOD-unit with our novel pipelined -bit integer
arithmetic cores (WMAC-units), GME further accelerates FHE workloads by .
Finally, we propose a Locality-Aware Block Scheduler (LABS) that exploits the
temporal locality available in FHE primitive blocks. Incorporating these
microarchitectural features and compiler optimizations, we create a synergistic
approach achieving average speedups of , , and
over Intel Xeon CPU, NVIDIA V100 GPU, and Xilinx FPGA
implementations, respectively
Reconfigurable acceleration of Recurrent Neural Networks
Recurrent Neural Networks (RNNs) have been successful in a wide range of applications involving temporal sequences such as natural language processing, speech recognition and video analysis. However, RNNs often require a significant amount of memory and computational resources. In addition, the recurrent nature and data dependencies in RNN computations can lead to system stall, resulting in low throughput and high latency.
This work describes novel parallel hardware architectures for accelerating RNN inference using Field-Programmable Gate Array (FPGA) technology, which considers the data dependencies and high computational costs of RNNs.
The first contribution of this thesis is a latency-hiding architecture that utilizes column-wise matrix-vector multiplication instead of the conventional row-wise operation to eliminate data dependencies and improve the throughput of RNN inference designs. This architecture is further enhanced by a configurable checkerboard tiling strategy which allows large dimensions of weight matrices, while supporting element-based parallelism and vector-based parallelism. The presented reconfigurable RNN designs show significant speedup over CPU, GPU, and other FPGA designs.
The second contribution of this thesis is a weight reuse approach for large RNN models with weights stored in off-chip memory, running with a batch size of one. A novel blocking-batching strategy is proposed to optimize the throughput of large RNN designs on FPGAs by reusing the RNN weights. Performance analysis is also introduced to enable FPGA designs to achieve the best trade-off between area, power consumption and performance. Promising power efficiency improvement has been achieved in addition to speeding up over CPU and GPU designs.
The third contribution of this thesis is a low latency design for RNNs based on a partially-folded hardware architecture. It also introduces a technique that balances initiation interval of multi-layer RNN inferences to increase hardware efficiency and throughput while reducing latency. The approach is evaluated on a variety of applications, including gravitational wave detection and Bayesian RNN-based ECG anomaly detection.
To facilitate the use of this approach, we open source an RNN template which enables the generation of low-latency FPGA designs with efficient resource utilization using high-level synthesis tools.Open Acces

AN ARCHITECTURE EVALUATION AND IMPLEMENTATION OF A SOFT GPGPU FOR FPGAs
Embedded and mobile systems must be able to execute a variety of different types of code, often with minimal available hardware. Many embedded systems now come with a simple processor and an FPGA, but not more energy-hungry components, such as a GPGPU. In this dissertation we present FlexGrip, a soft architecture which allows for the execution of GPGPU code on an FPGA without the need to recompile the design. The architecture is optimized for FPGA implementation to effectively support the conditional and thread-based execution characteristics of GPGPU execution without FPGA design recompilation. This architecture supports direct CUDA compilation to a binary which is executable on the FPGA-based GPGPU. Our architecture is customizable, thus providing the FPGA designer with a selection of GPGPU cores which display performance versus area tradeoffs.
This dissertation describes the FlexGrip architecture in detail and showcases the benefits by evaluating the design for a collection of five standard CUDA benchmarks which are compiled using standard GPGPU compilation tools. Speedups of 23x, on average, versus a MicroBlaze microprocessor are achieved for designs which take advantage of the conditional execution capabilities offered by FlexGrip. We also show FlexGrip can achieve an 80% average reduction of dynamic energy versus the MicroBlaze microprocessor.
The dissertation furthers discussion by exploring application-customized versions of the soft GPGPU, thus exploiting the overlay architecture. We expand the architecture to multiple processors per GPGPU and optimizing away features which are not needed by certain classes of applications. These optimizations, which include the effective use of block RAMs and DSP blocks, are critical to the performance of FlexGrip. By implementing a 2 GPGPU design, we show speedups of 44x on average versus a MicroBlaze microprocessor. Application-customized versions of the soft GPGPU can be used to further reduce dynamic energy consumption by an average of 14%.
To complete this thesis, we augmented a GPGPU cycle accurate simulator to emulate FlexGrip and evaluate different levels of cache design spaces. We show performance increases for select benchmarks, however, we also show that 64% and 45% of benchmarks exhibited performance decreases when L1D cache was enabled for the 1 SMP and 2 SMP configurations, and only one benchmark showed performance improvement when the L2 cache was enabled
SNAVA—A real-time multi-FPGA multi-model spiking neural network simulation architecture

This parallel architecture is implemented in modern Field-Programmable Gate Arrays (FPGAs) devices to provide high performance execution and flexibility to support large-scale SNN models. Flexibility is defined in terms of programmability, which allows easy synapse and neuron implementation. This has been achieved by using a special-purpose Processing Elements (PEs) for computing SNNs, and analyzing and customizing the instruction set according to the processing needs to achieve maximum performance with minimum resources. The parallel architecture is interfaced with customized Graphical User Interfaces (GUIs) to configure the SNN's connectivity, to compile the neuron-synapse model and to monitor SNN's activity. Our contribution intends to provide a tool that allows to prototype SNNs faster than on CPU/GPU architectures but significantly cheaper than fabricating a customized neuromorphic chip. The Advantage of Custom Microprocessors for Stochastic Gradient Descent in Graph-Based Robot Localization and Mapping
Simultaneous Localization and Mapping (SLAM) describes a class of problems facing a large and growing field of autonomous systems -- from self-driving cars, to interplanetary rovers, to home automation products. Unfortunately this is a complex task where sophisticated algorithms and data structures are required to navigate a wide range of uncharted environments. Furthermore, most mobile robots need to run these tasks near real-time onboard an embedded controller with limited power and compute resources. To address this problem we explore the stochastic gradient descent (SGD) variant of graph solvers for SLAM and observe a tradeoff between various execution architectures and overall execution speed. Based on these observations, we propose a custom multiprocessor design that relaxes memory-coherency constraints between parallel cores while avoiding divergent behavior. We introduce a specialized streaming-tree interconnect that provides increased performance while using fewer resources compared to state-of-art GPU/CPU implementations of SGD. Finally, we discuss applications of unconventional architectural paradigms like over-provisioned “dark processors” and specialized data partitioning that provided a unique performance advantage for our particular design
