    Exploiting BSP Abstractions for Compiler Based Optimizations of GPU Applications on multi-GPU Systems

    Graphics Processing Units (GPUs) are accelerators for computers and provide massive amounts of computational power and bandwidth for amenable applications. While effectively utilizing an individual GPU already requires a high level of skill, effectively utilizing multiple GPUs introduces completely new types of challenges. This work sets out to investigate how the hierarchical execution model of GPUs can be exploited to simplify the utilization of such multi-GPU systems. The investigation starts with an analysis of the memory access patterns exhibited by applications from common GPU benchmark suites. Memory access patterns are collected using custom instrumentation and a simple simulation then analyzes the patterns and identifies implicit communication across the different levels of the execution hierarchy. The analysis reveals that for most GPU applications memory accesses are highly localized and there exists a way to partition the workload so that the communication volume grows slower than the aggregated bandwidth for growing numbers of GPUs. Next, an application model based on Z-polyhedra is derived that formalizes the distribution of work across multiple GPUs and allows the identification of data dependencies. The model is then used to implement a prototype compiler that consumes single-GPU programs and produces executables that distribute GPU workloads across all available GPUs in a system. It uses static analysis to identify memory access patterns and polyhedral code generation in combination with a dynamic tracking system to efficiently resolve data dependencies. The prototype is implemented as an extension to the LLVM/Clang compiler and published in full source. The prototype compiler is then evaluated using a set of benchmark applications. While the prototype is limited in its applicability by technical issues, it provides impressive speedups of up to 12.4x on 16 GPUs for amenable applications. An in-depth analysis of the application runtime reveals that dependency resolution takes up less than 10% of the runtime, often significantly less. A discussion follows and puts the work into context by presenting and differentiating related work, reflecting critically on the work itself and an outlook of the aspects that could be explored as part of this research.     dissertationSparse matrix codes are found in numerous applications ranging from iterative numerical solvers to graph analytics. Achieving high performance on these codes has however been a significant challenge, mainly due to array access indirection, for example, of the form A[B[i]]. Indirect accesses make precise dependence analysis impossible at compile-time, and hence prevent many parallelizing and locality optimizing transformations from being applied. The expert user relies on manually written libraries to tailor the sparse code and data representations best suited to the target architecture from a general sparse matrix representation. However libraries have limited composability, address very specific optimization strategies, and have to be rewritten as new architectures emerge. In this dissertation, we explore the use of the inspector/executor methodology to accomplish the code and data transformations to tailor high performance sparse matrix representations. We devise and embed abstractions for such inspector/executor transformations within a compiler framework so that they can be composed with a rich set of existing polyhedral compiler transformations to derive complex transformation sequences for high performance. We demonstrate the automatic generation of inspector/executor code, which orchestrates code and data transformations to derive high performance representations for the Sparse Matrix Vector Multiply kernel in particular. We also show how the same transformations may be integrated into sparse matrix and graph applications such as Sparse Matrix Matrix Multiply and Stochastic Gradient Descent, respectively. The specific constraints of these applications, such as problem size and dependence structure, necessitate unique sparse matrix representations that can be realized using our transformations. Computations such as Gauss Seidel, with loop carried dependences at the outer most loop necessitate different strategies for high performance. Specifically, we organize the computation into level sets or wavefronts of irregular size, such that iterations of a wavefront may be scheduled in parallel but different wavefronts have to be synchronized. We demonstrate automatic code generation of high performance inspectors that do explicit dependence testing and level set construction at runtime, as well as high performance executors, which are the actual parallelized computations. For the above sparse matrix applications, we automatically generate inspector/executor code comparable in performance to manually tuned libraries

    Productive Programming Systems for Heterogeneous Supercomputers

    The majority of today's scientific and data analytics workloads are still run on relatively energy inefficient, heavyweight, general-purpose processing cores, often referred to in the literature as latency-oriented architectures. The flexibility of these architectures and the programmer aids included (e.g. large and deep cache hierarchies, branch prediction logic, pre-fetch logic) makes them flexible enough to run a wide range of applications fast. However, we have started to see growth in the use of lightweight, simpler, energy-efficient, and functionally constrained cores. These architectures are commonly referred to as throughput-oriented. Within each shared memory node, the computational backbone of future throughput-oriented HPC machines will consist of large pools of lightweight cores. The first wave of throughput-oriented computing came in the mid 2000's with the use of GPUs for general-purpose and scientific computing. Today we are entering the second wave of throughput-oriented computing, with the introduction of NVIDIA Pascal GPUs, Intel Knights Landing Xeon Phi processors, the Epiphany Co-Processor, the Sunway MPP, and other throughput-oriented architectures that enable pre-exascale computing. However, while the majority of the FLOPS in designs for future HPC systems come from throughput-oriented architectures, they are still commonly paired with latency-oriented cores which handle management functions and lightweight/un-parallelizable computational kernels. Hence, most future HPC machines will be heterogeneous in their processing cores. However, the heterogeneity of future machines will not be limited to the processing elements. Indeed, heterogeneity will also exist in the storage, networking, memory, and software stacks of future supercomputers. As a result, it will be necessary to combine many different programming models and libraries in a single application. How to do so in a programmable and well-performing manner is an open research question. This thesis addresses this question using two approaches. First, we explore using managed runtimes on HPC platforms. As a result of their high-level programming models, these managed runtimes have a long history of supporting data analytics workloads on commodity hardware, but often come with overheads which make them less common in the HPC domain. Managed runtimes are also not supported natively on throughput-oriented architectures. Second, we explore the use of a modular programming model and work-stealing runtime to compose the programming and scheduling of multiple third-party HPC libraries. This approach leverages existing investment in HPC libraries, unifies the scheduling of work on a platform, and is designed to quickly support new programming model and runtime extensions. In support of these two approaches, this thesis also makes novel contributions in tooling for future supercomputers. We demonstrate the value of checkpoints as a software development tool on current and future HPC machines, and present novel techniques in performance prediction across heterogeneous cores

    pocl: A Performance-Portable OpenCL Implementation

    OpenCL is a standard for parallel programming of heterogeneous systems. The benefits of a common programming standard are clear; multiple vendors can provide support for application descriptions written according to the standard, thus reducing the program porting effort. While the standard brings the obvious benefits of platform portability, the performance portability aspects are largely left to the programmer. The situation is made worse due to multiple proprietary vendor implementations with different characteristics, and, thus, required optimization strategies. In this paper, we propose an OpenCL implementation that is both portable and performance portable. At its core is a kernel compiler that can be used to exploit the data parallelism of OpenCL programs on multiple platforms with different parallel hardware styles. The kernel compiler is modularized to perform target-independent parallel region formation separately from the target-specific parallel mapping of the regions to enable support for various styles of fine-grained parallel resources such as subword SIMD extensions, SIMD datapaths and static multi-issue. Unlike previous similar techniques that work on the source level, the parallel region formation retains the information of the data parallelism using the LLVM IR and its metadata infrastructure. This data can be exploited by the later generic compiler passes for efficient parallelization. The proposed open source implementation of OpenCL is also platform portable, enabling OpenCL on a wide range of architectures, both already commercialized and on those that are still under research. The paper describes how the portability of the implementation is achieved.     Automatically Harnessing Sparse Acceleration

    Sparse linear algebra is central to many scientific programs, yet compilers fail to optimize it well. High-performance libraries are available, but adoption costs are significant. Moreover, libraries tie programs into vendor-specific software and hardware ecosystems, creating non-portable code. In this paper, we develop a new approach based on our specification Language for implementers of Linear Algebra Computations (LiLAC). Rather than requiring the application developer to (re)write every program for a given library, the burden is shifted to a one-off description by the library implementer. The LiLAC-enabled compiler uses this to insert appropriate library routines without source code changes. LiLAC provides automatic data marshaling, maintaining state between calls and minimizing data transfers. Appropriate places for library insertion are detected in compiler intermediate representation, independent of source languages. We evaluated on large-scale scientific applications written in FORTRAN; standard C/C++ and FORTRAN benchmarks; and C++ graph analytics kernels. Across heterogeneous platforms, applications and data sets we show speedups of 1.1×\times to over 10×\times without user intervention.Comment: Accepted to CC 202

    The problem of automatically generating hardware modules from high level application representations has been at the forefront of EDA research during the last few years. In this Dissertation we introduce a methodology to automatically synthesize hardware accelerators from OpenCL applications. OpenCL is a recent industry supported standard for writing programs that execute on multicore platforms and accelerators such as GPUs. Our methodology maps OpenCL kernels into hardware accelerators based on architectural templates that explicitly decouple computation from memory communication whenever this is possible. The templates can be tuned to provide a wide repertoire of accelerators that meet user performance requirements and FPGA device characteristics. Furthermore a set of high- and low-level compiler optimizations is applied to generate optimized accelerators. Our experimental evaluation shows that the generated accelerators are tuned efficiently to match the applications memory access pattern and computational complexity and to achieve user performance requirements. An important objective of our tool is to expand the FPGA development user base to software engineers thereby expanding the scope of FPGAs beyond the realm of hardware design.To πρόβλημα της αυτόματης δημιουργίας μονάδων υλικό από παραστάσεις υψηλού επιπέδου εφαρμογής είναι στην πρώτη γραμμή της EDA έρευνας κατά τη διάρκεια των τελευταίων ετών. Σε αυτή την διατριβή παρουσιάζουμε μια μεθοδολογία για τη αυτόματη σύνθεση επιταχυντές υλικού από εφαρμογές OpenCL. OpenCL είναι ένα πρόσφατο πρότυπο για τη σύνταξη των προγραμμάτων που εκτελούνται σε πλατφόρμες πολλαπλών πυρήνων και επιταχυντές όπως GPUs. Η μεθοδολογία μας μετατρέπει προγράμματα OpenCL σε επιταχυντές υλικού με βάση αρχιτεκτονικά πρότυπα που ρητά αποσυνδέει τους υπολογισμούς από την μεταφορά δεδομένων από/προς την μνήμη όποτε αυτό είναι δυνατό. Τα πρότυπα μπορούν να συντονιστούν ώστε να παρέχουν ένα ευρύ ρεπερτόριο από επιταχυντές που πληρούν τις απαιτήσεις απόδοσης των χρηστών και τα χαρακτηριστικά της συσκευής FPGA. Επιπλέον ένα σύνολο υψηλής και χαμηλής στάθμης βελτιστοποιήσεις μεταγλωττιστή εφαρμόζεται για να παράγει βελτιστοποιημένα επιταχυντές. Η πειραματική αξιολόγηση δείχνει ότι οι επιταχυντές που δημιουργούνται αποτελεσματικά συντονισμένοι για να ταιριάζει με το μοτίβο πρόσβασης στην μνήμη κάθε εφαρμογής και την υπολογιστική πολυπλοκότητα και να επιτύχουν τις απαιτήσεις απόδοσης των χρηστών.     Lightweight Modular Staging and Embedded Compilers:Abstraction without Regret for High-Level High-Performance Programming

    Programs expressed in a high-level programming language need to be translated to a low-level machine dialect for execution. This translation is usually accomplished by a compiler, which is able to translate any legal program to equivalent low-level code. But for individual source programs, automatic translation does not always deliver good results: Software engineering practice demands generalization and abstraction, whereas high performance demands specialization and concretization. These goals are at odds, and compilers can only rarely translate expressive high-level programs tomodern hardware platforms in a way that makes best use of the available resources. Explicit program generation is a promising alternative to fully automatic translation. Instead of writing down the program and relying on a compiler for translation, developers write a program generator, which produces a specialized, efficient, low-level program as its output. However, developing high-quality program generators requires a very large effort that is often hard to amortize. In this thesis, we propose a hybrid design: Integrate compilers into programs so that programs can take control of the translation process, but rely on libraries of common compiler functionality for help. We present Lightweight Modular Staging (LMS), a generative programming approach that lowers the development effort significantly. LMS combines program generator logic with the generated code in a single program, using only types to distinguish the two stages of execution. Through extensive use of component technology, LMS makes a reusable and extensible compiler framework available at the library level, allowing programmers to tightly integrate domain-specific abstractions and optimizations into the generation process, with common generic optimizations provided by the framework. Compared to previous work on programgeneration, a key aspect of our design is the use of staging not only as a front-end, but also as a way to implement internal compiler passes and optimizations, many of which can be combined into powerful joint simplification passes. LMS is well suited to develop embedded domain specific languages (DSLs) and has been used to develop powerful performance-oriented DSLs for demanding domains such as machine learning, with code generation for heterogeneous platforms including GPUs. LMS has also been used to generate SQL for embedded database queries and JavaScript for web applications

    FPGA Based Acceleration of Matrix Decomposition and Clustering Algorithm Using High Level Synthesis

    FPGAs have shown great promise for accelerating computationally intensive algorithms. However, FPGA-based accelerator design is tedious and time consuming if we rely on traditional HDL based design method. Recent introduction of Altera SDK for OpenCL (AOCL) high level synthesis tool enables developers to utilize FPGA’s potential without long development time and extensive hardware knowledge. AOCL is used in this thesis to accelerate computationally intensive algorithms in the field of machine learning and scientific computing. The algorithms studied are k-means clustering, k-nearest neighbour search, N-body simulation and LU decomposition. The performance and power consumption of the algorithms synthesized using AOCL for FPGA are evaluated against state of the art CPU and GPU implementations. The k-means clustering and k-nearest neighbor kernels designed for FPGA significantly out-performed optimized CPU implementations while achieving similar or better power efficiency than that of GPU
