    Domain-Specific Computing Architectures and Paradigms

    We live in an exciting era where artificial intelligence (AI) is fundamentally shifting the dynamics of industries and businesses around the world. AI algorithms such as deep learning (DL) have drastically advanced the state-of-the-art cognition and learning capabilities. However, the power of modern AI algorithms can only be enabled if the underlying domain-specific computing hardware can deliver orders of magnitude more performance and energy efficiency. This work focuses on this goal and explores three parts of the domain-specific computing acceleration problem; encapsulating specialized hardware and software architectures and paradigms that support the ever-growing processing demand of modern AI applications from the edge to the cloud. This first part of this work investigates the optimizations of a sparse spatio-temporal (ST) cognitive system-on-a-chip (SoC). This design extracts ST features from videos and leverages sparse inference and kernel compression to efficiently perform action classification and motion tracking. The second part of this work explores the significance of dataflows and reduction mechanisms for sparse deep neural network (DNN) acceleration. This design features a dynamic, look-ahead index matching unit in hardware to efficiently discover fine-grained parallelism, achieving high energy efficiency and low control complexity for a wide variety of DNN layers. Lastly, this work expands the scope to real-time machine learning (RTML) acceleration. A new high-level architecture modeling framework is proposed.     A distributed processor state management architecture for large-window processors

    Processor architectures with large instruction windows have been proposed to expose more instruction-level parallelism (ILP) and increase performance. Some of the proposed architectures replace a re-order buffer (ROB) with a check-pointing mechanism and an out-of-order release of processor resources. Check-pointing, however, leads to an imprecise processor state recovery on mis-predicted branches and exceptions and re-execution of correct-path instructions after state recovery. It also requires large register files complicating renaming, allocation and release of physical registers. This paper proposes a new processor architecture called a Multi-State Processor (MSP). The MSP does not use check-pointing, avoids the above-mentioned problems, and has a fast, distributed state recovery mechanism. The MSP uses a novel register management architecture allowing implementation of large register files with simpler and more scalable register allocation, renaming, and release. It is also key to precise processor state recovery mechanism. The MSP is shown to improve IPC by 14%, on average, for integer SPEC CPU2000 benchmarks compared to a check-pointing based mechanism ([2]) when a fast and simple branch predictor is used. With a very aggressive branch predictor the IPC improvement is 1%, on average, and 3% if some of the programs are optimized for the MSP. The MSP also reduces the average number of executed instructions by 16.5% (12% for the aggressive branch predictor), mostly due to precise state recovery.     IMPROVING MULTIBANK MEMORY ACCESS PARALLELISM ON SIMT ARCHITECTURES

    Memory mapping has traditionally been an important optimization problem for high-performance parallel systems. Today, these issues are increasingly affecting a much wider range of platforms. Several techniques have been presented to solve bank conflicts and reduce memory access latency but none of them turns out to be generally applicable to different application contexts. One of the ambitious goals of this Thesis is to contribute to modelling the problem of the memory mapping in order to find an approach that generalizes on existing conflict-avoiding techniques, supporting a systematic exploration of feasible mapping schemes

    Data Resource Management in Throughput Processors

    Graphics Processing Units (GPUs) are becoming common in data centers for tasks like neural network training and image processing due to their high performance and efficiency. GPUs maintain high throughput by running thousands of threads simultaneously, issuing instructions from ready threads to hide latency in others that are stalled. While this is effective for keeping the arithmetic units busy, the challenge in GPU design is moving the data for computation at the same high rate. Any inefficiency in data movement and storage will compromise the throughput and energy efficiency of the system. Since energy consumption and cooling make up a large part of the cost of provisioning and running and a data center, making GPUs more suitable for this environment requires removing the bottlenecks and overheads that limit their efficiency. The performance of GPU workloads is often limited by the throughput of the memory resources inside each GPU core, and though many of the power-hungry structures in CPUs are not found in GPU designs, there is overhead for storing each thread's state. When sharing a GPU between workloads, contention for resources also causes interference and slowdown. This thesis develops techniques to manage and streamline the data movement and storage resources in GPUs in each of these places. The first part of this thesis resolves data movement restrictions inside each GPU core. The GPU memory system is optimized for sequential accesses, but many workloads load data in irregular or transposed patterns that cause a throughput bottleneck even when all loads are cache hits. This work identifies and leverages opportunities to merge requests across threads before sending them to the cache. While requests are waiting for merges, they can be reordered to achieve a higher cache hit rate. These methods yielded a 38% speedup for memory throughput limited workloads. Another opportunity for optimization is found in the register file. Since it must store the registers for thousands of active threads, it is the largest on-chip data storage structure on a GPU. The second work in this thesis replaces the register file with a smaller, more energy-efficient register buffer. Compiler directives allow the GPU to know ahead of time which registers will be accessed, allowing the hardware to store only the registers that will be imminently accessed in the buffer, with the rest moved to main memory. This technique reduced total GPU energy by 11%. Finally, in a data center, many different applications will be launching GPU jobs, and just as multiple processes can share the same CPU to increase its utilization, running multiple workloads on the same GPU can increase its overall throughput. However, co-runners interfere with each other in unpredictable ways, especially when sharing memory resources. The final part of this thesis controls this interference, allowing a GPU to be shared between two tiers of workloads: one tier with a high performance target and another suitable for batch jobs without deadlines. At a 90% performance target, this technique increased GPU throughput by 9.3%. GPUs' high efficiency and performance makes them a valuable accelerator in the data center. The contributions in this thesis further increase their efficiency by removing data movement and storage overheads and unlock additional performance by enabling resources to be shared between workloads while controlling interference.PHDComputer Science & EngineeringUniversity of Michigan, Horace H.     COMET: A Cross-Layer Optimized Optical Phase Change Main Memory Architecture

    Traditional DRAM-based main memory systems face several challenges with memory refresh overhead, high latency, and low throughput as the industry moves towards smaller DRAM cells. These issues have been exacerbated by the emergence of data-intensive applications in recent years. Memories based on phase change materials (PCMs) offer promising solutions to these challenges. PCMs store data in the material's phase, which can shift between amorphous and crystalline states when external thermal energy is supplied. This is often achieved using electrical pulses. Alternatively, using laser pulses and integration with silicon photonics offers a unique opportunity to realize high-bandwidth and low-latency photonic memories. Such a memory system may in turn open the possibility of realizing fully photonic computing systems. But to realize photonic memories, several challenges that are unique to the photonic domain such as crosstalk, optical loss management, and laser power overhead have to be addressed. In this work, we present COMET, the first cross-layer optimized optical main memory architecture that uses PCMs. In architecting COMET, we explore how to use silicon photonics and PCMs together to design a large-scale main memory system while addressing associated challenges. We explore challenges and propose solutions at the PCM cell, photonic memory circuit, and memory architecture levels. Based on our evaluations, COMET offers 7.1x better bandwidth, 15.1x lower EPB, and 3x lower latencies than the best-known prior work on photonic main memory architecture design
