Macroservers: An Execution Model for DRAM Processor-In-Memory Arrays
The emergence of semiconductor fabrication technology allowing a tight coupling between high-density DRAM and CMOS logic on the same chip has led to the important new class of Processor-In-Memory (PIM) architectures. Newer developments provide powerful parallel processing capabilities on the chip, exploiting the facility to load wide words in single memory accesses and supporting complex address manipulations in the memory. Furthermore, large arrays of PIMs can be arranged into a massively parallel architecture. In this report, we describe an object-based programming model based on the notion of a macroserver. Macroservers encapsulate a set of variables and methods; threads, spawned by the activation of methods, operate asynchronously on the variables' state space. Data distributions provide a mechanism for mapping large data structures across the memory region of a macroserver, while work distributions allow explicit control of bindings between threads and data. Both data and work distributuions are first-class objects of the model, supporting the dynamic management of data and threads in memory. This offers the flexibility required for fully exploiting the processing power and memory bandwidth of a PIM array, in particular for irregular and adaptive applications. Thread synchronization is based on atomic methods, condition variables, and futures. A special type of lightweight macroserver allows the formulation of flexible scheduling strategies for the access to resources, using a monitor-like mechanism

MIND is designed to operate either in conjunction with other conventional microprocessors or in standalone arrays of like devices. GraphStep: A System Architecture for Sparse-Graph Algorithms
Many important applications are organized around
long-lived, irregular sparse graphs (e.g., data and knowledge
bases, CAD optimization, numerical problems, simulations). The
graph structures are large, and the applications need regular
access to a large, data-dependent portion of the graph for each
operation (e.g., the algorithm may need to walk the graph, visiting
all nodes, or propagate changes through many nodes in the
graph). On conventional microprocessors, the graph structures
exceed on-chip cache capacities, making main-memory bandwidth
and latency the key performance limiters. To avoid this
“memory wall,” we introduce a concurrent system architecture
for sparse graph algorithms that places graph nodes in small
distributed memories paired with specialized graph processing
nodes interconnected by a lightweight network. This gives us a
scalable way to map these applications so that they can exploit
the high-bandwidth and low-latency capabilities of embedded
memories (e.g., FPGA Block RAMs). On typical spreading activation
queries on the ConceptNet Knowledge Base, a sample
application, this translates into an order of magnitude speedup
per FPGA compared to a state-of-the-art Pentium processor
Accelerating Neural Network Inference with Processing-in-DRAM: From the Edge to the Cloud
Neural networks (NNs) are growing in importance and complexity. A neural
network's performance (and energy efficiency) can be bound either by
computation or memory resources. The processing-in-memory (PIM) paradigm, where
computation is placed near or within memory arrays, is a viable solution to
accelerate memory-bound NNs. However, PIM architectures vary in form, where
different PIM approaches lead to different trade-offs. Our goal is to analyze,
discuss, and contrast DRAM-based PIM architectures for NN performance and
energy efficiency. To do so, we analyze three state-of-the-art PIM
architectures: (1) UPMEM, which integrates processors and DRAM arrays into a
single 2D chip; (2) Mensa, a 3D-stack-based PIM architecture tailored for edge
devices; and (3) SIMDRAM, which uses the analog principles of DRAM to execute
bit-serial operations. Our analysis reveals that PIM greatly benefits
memory-bound NNs: (1) UPMEM provides 23x the performance of a high-end GPU when
the GPU requires memory oversubscription for a general matrix-vector
multiplication kernel; (2) Mensa improves energy efficiency and throughput by
3.0x and 3.1x over the Google Edge TPU for 24 Google edge NN models; and (3)
SIMDRAM outperforms a CPU/GPU by 16.7x/1.4x for three binary NNs. We conclude
that the ideal PIM architecture for NN models depends on a model's distinct

NDC: Analyzing the impact of 3D-stacked memory+logic devices on MapReduce workloads
pre-printWhile Processing-in-Memory has been investigated for decades, it has not been embraced commercially. A number of emerging technologies have renewed interest in this topic. In particular, the emergence of 3D stacking and the imminent release of Micron's Hybrid Memory Cube device have made it more practical to move computation near memory. However, the literature is missing a detailed analysis of a killer application that can leverage a Near Data Computing (NDC) architecture. This paper focuses on in-memory MapReduce workloads that are commercially important and are especially suitable for NDC because of their embarrassing parallelism and largely localized memory accesses. The NDC architecture incorporates several simple processing cores on a separate, non-memory die in a 3D-stacked memory package; these cores can perform Map operations with efficient memory access and without hitting the bandwidth wall. This paper describes and evaluates a number of key elements necessary in realizing efficient NDC operation: (i) low-EPI cores, (ii) long daisy chains of memory devices, (iii) the dynamic activation of cores and SerDes links. Compared to a baseline that is heavily optimized for MapReduce execution, the NDC design yields up to 15X reduction in execution time and 18X reduction in system energy

dissertationIn-memory big data applications are growing in popularity, including in-memory versions of the MapReduce framework. The move away from disk-based datasets shifts the performance bottleneck from slow disk accesses to memory bandwidth. MapReduce is a data-parallel application, and is therefore amenable to being executed on as many parallel processors as possible, with each processor requiring high amounts of memory bandwidth. We propose using Near Data Computing (NDC) as a means to develop systems that are optimized for in-memory MapReduce workloads, offering high compute parallelism and even higher memory bandwidth. This dissertation explores three different implementations and styles of NDC to improve MapReduce execution. First, we use 3D-stacked memory+logic devices to process the Map phase on compute elements in close proximity to database splits. Second, we attempt to replicate the performance characteristics of the 3D-stacked NDC using only commodity memory and inexpensive processors to improve performance of both Map and Reduce phases. Finally, we incorporate fixed-function hardware accelerators to improve sorting performance within the Map phase. This dissertation shows that it is possible to improve in-memory MapReduce performance by potentially two orders of magnitude by designing system and memory architectures that are specifically tailored to that end
A Memory-Centric Customizable Domain-Specific FPGA Overlay for Accelerating Machine Learning Applications
Low latency inferencing is of paramount importance to a wide range of real time and userfacing Machine Learning (ML) applications. Field Programmable Gate Arrays (FPGAs) offer unique advantages in delivering low latency as well as energy efficient accelertors for low latency inferencing. Unfortunately, creating machine learning accelerators in FPGAs is not easy, requiring the use of vendor specific CAD tools and low level digital and hardware microarchitecture design knowledge that the majority of ML researchers do not possess. The continued refinement of High Level Synthesis (HLS) tools can reduce but not eliminate the need for hardware-specific design knowledge. The designs by these tools can also produce inefficient use of FPGA resources that ultimately limit the performance of the neural network. This research investigated a new FPGA-based software-hardware codesigned overlay architecture that opens the advantages of FPGAs to the broader ML user community. As an overlay, the proposed design allows rapid coding and deployment of different ML network configurations and different data-widths, eliminating the prior barrier of needing to resynthesize each design. This brings important attributes of code portability over different FPGA families. The proposed overlay design is a Single-Instruction-Multiple-Data (SIMD) Processor-In-Memory (PIM) architecture developed as a programmable overlay for FPGAs. In contrast to point designs, it can be programmed to implement different types of machine learning algorithms. The overlay architecture integrates bit-serial Arithmetic Logic Units (ALUs) with distributed Block RAMs (BRAMs). The PIM design increases the size of arithmetic operations and on-chip storage capacity. User-visible inference latencies are reduced by exploiting concurrent accesses to network parameters (weights and biases) and partial results stored throughout the distributed BRAMs. Run-time performance comparisons show that the proposed design achieves a speedup compared to HLS-based or custom-tuned equivalent designs. Notably, the proposed design is programmable, allowing rapid design space exploration without the need to resynthesize when changing ML algorithms on the FPGA

Complex Query Operators on Modern Parallel Architectures
Identifying interesting objects from a large data collection is a fundamental problem for multi-criteria decision making applications.In Relational Database Management Systems (RDBMS), the most popular complex query operators used to solve this type of problem are the Top-K selection operator and the Skyline operator.Top-K selection is tasked with retrieving the k-highest ranking tuples from a given relation, as determined by a user-defined aggregation function.Skyline selection retrieves those tuples with attributes offering (pareto) optimal trade-offs in a given relation.Efficient Top-K query processing entails minimizing tuple evaluations by utilizing elaborate processing schemes combined with sophisticated data structures that enable early termination.Skyline query evaluation involves supporting processing strategies which are geared towards early termination and incomparable tuple pruning.The rapid increase in memory capacity and decreasing costs have been the main drivers behind the development of main-memory database systems.Although the act of migrating query processing in-memory has created many opportunities to improve the associated query latency, attaining such improvements has been very challenging due to the growing gap between processor and main memory speeds.Addressing this limitation has been made easier by the rapid proliferation of multi-core and many-core architectures.However, their utilization in real systems has been hindered by the lack of suitable parallel algorithms that focus on algorithmic efficiency.In this thesis, we study in depth the Top-K and Skyline selection operators, in the context of emerging parallel architectures.Our ultimate goal is to provide practical guidelines for developing work-efficient algorithms suitable for parallel main memory processing.We concentrate on multi-core (CPU), many-core (GPU), and processing-in-memory architectures (PIM), developing solutions optimized for high throughout and low latency.The first part of this thesis focuses on Top-K selection, presenting the specific details of early termination algorithms that we developed specifically for parallel architectures and various types of accelerators (i.e. GPU, PIM).The second part of this thesis, concentrates on Skyline selection and the development of a massively parallel load balanced algorithm for PIM architectures.Our work consolidates performance results across different parallel architectures using synthetic and real data on variable query parameters and distributions for both of the aforementioned problems.The experimental results demonstrate several orders of magnitude better throughput and query latency, thus validating the effectiveness of our proposed solutions for the Top-K and Skyline selection operators
Performance Characteristics of an Intelligent Memory System
The memory system is increasingly becoming a performance bottleneck. Several intelligent memory systems, such as the ActivePages, DIVA, and IRAM architectures, have been proposed to alleviate the processor-memory bottleneck. This thesis presents the Memory Arithmetic Unit and Interface (MAUI) architecture. The MAUI architecture combines ideas of the ActivePages, DIVA, and ULMT architectures into a new intelligent memory system. A simulator of the MAUI architecture was added to the SimpleScalar v4.0 toolset. Simulation results indicate that the MAUI architecture provides the largest application speedup when operating on datasets that are much too large to fit in the processor's cache and when integrated with systems using a high performance DRAM system and a low performance processor. By coupling a 2000 MHz processor with an 800 MHz DRDRAM DRAM system, the Stream benchmark, originally written by John D. McCalpin, completed 121% faster in simulations when optimized to use the MAUI architecture
