Affective Image Content Analysis: Two Decades Review and New Perspectives
Images can convey rich semantics and induce various emotions in viewers.
Recently, with the rapid advancement of emotional intelligence and the
explosive growth of visual data, extensive research efforts have been dedicated
to affective image content analysis (AICA). In this survey, we will
comprehensively review the development of AICA in the recent two decades,
especially focusing on the state-of-the-art methods with respect to three main
challenges -- the affective gap, perception subjectivity, and label noise and
absence. We begin with an introduction to the key emotion representation models
that have been widely employed in AICA and description of available datasets
for performing evaluation with quantitative comparison of label noise and
dataset bias. We then summarize and compare the representative approaches on
(1) emotion feature extraction, including both handcrafted and deep features,
(2) learning methods on dominant emotion recognition, personalized emotion
prediction, emotion distribution learning, and learning from noisy data or few
labels, and (3) AICA based applications. Finally, we discuss some challenges
and promising research directions in the future, such as image content and
context understanding, group emotion clustering, and viewer-image interaction.Comment: Accepted by IEEE TPAM
Multimodal Emotion Recognition on RAVDESS Dataset Using Transfer Learning
Emotion Recognition is attracting the attention of the research community due to the
multiple areas where it can be applied, such as in healthcare or in road safety systems. In this paper,
we propose a multimodal emotion recognition system that relies on speech and facial information.
For the speech-based modality, we evaluated several transfer-learning techniques, more specifically,
embedding extraction and Fine-Tuning. The best accuracy results were achieved when we fine-tuned
the CNN-14 of the PANNs framework, confirming that the training was more robust when it did not
start from scratch and the tasks were similar. Regarding the facial emotion recognizers, we propose a
framework that consists of a pre-trained Spatial Transformer Network on saliency maps and facial
images followed by a bi-LSTM with an attention mechanism. The error analysis reported that the
frame-based systems could present some problems when they were used directly to solve a videobased task despite the domain adaptation, which opens a new line of research to discover new ways
to correct this mismatch and take advantage of the embedded knowledge of these pre-trained models.
Finally, from the combination of these two modalities with a late fusion strategy, we achieved 80.08%
accuracy on the RAVDESS dataset on a subject-wise 5-CV evaluation, classifying eight emotions. The
results revealed that these modalities carry relevant information to detect users’ emotional state and
their combination enables improvement of system performance
Enhancing biofeedback-driven self-guided virtual reality exposure therapy through arousal detection from multimodal data using machine learning
Virtual reality exposure therapy (VRET) is a novel intervention technique that allows individuals to experience anxiety-evoking stimuli in a safe environment, recognise specific triggers and gradually increase their exposure to perceived threats. Public-speaking anxiety (PSA) is a prevalent form of social anxiety, characterised by stressful arousal and anxiety generated when presenting to an audience. In self-guided VRET, participants can gradually increase their tolerance to exposure and reduce anxiety-induced arousal and PSA over time. However, creating such a VR environment and determining physiological indices of anxiety-induced arousal or distress is an open challenge. Environment modelling, character creation and animation, psychological state determination and the use of machine learning (ML) models for anxiety or stress detection are equally important, and multi-disciplinary expertise is required. In this work, we have explored a series of ML models with publicly available data sets (using electroencephalogram and heart rate variability) to predict arousal states. If we can detect anxiety-induced arousal, we can trigger calming activities to allow individuals to cope with and overcome distress. Here, we discuss the means of effective selection of ML models and parameters in arousal detection. We propose a pipeline to overcome the model selection problem with different parameter settings in the context of virtual reality exposure therapy. This pipeline can be extended to other domains of interest where arousal detection is crucial. Finally, we have implemented a biofeedback framework for VRET where we successfully provided feedback as a form of heart rate and brain laterality index from our acquired multimodal data for psychological intervention to overcome anxiety
3d Face Reconstruction And Emotion Analytics With Part-Based Morphable Models
3D face reconstruction and facial expression analytics using 3D facial data are new
and hot research topics in computer graphics and computer vision. In this proposal, we first
review the background knowledge for emotion analytics using 3D morphable face model, including
geometry feature-based methods, statistic model-based methods and more advanced
deep learning-bade methods. Then, we introduce a novel 3D face modeling and reconstruction
solution that robustly and accurately acquires 3D face models from a couple of images
captured by a single smartphone camera. Two selfie photos of a subject taken from the
front and side are used to guide our Non-Negative Matrix Factorization (NMF) induced
part-based face model to iteratively reconstruct an initial 3D face of the subject. Then, an
iterative detail updating method is applied to the initial generated 3D face to reconstruct
facial details through optimizing lighting parameters and local depths. Our iterative 3D
face reconstruction method permits fully automatic registration of a part-based face representation
to the acquired face data and the detailed 2D/3D features to build a high-quality
3D face model. The NMF part-based face representation learned from a 3D face database
facilitates effective global and adaptive local detail data fitting alternatively. Our system
is flexible and it allows users to conduct the capture in any uncontrolled environment. We
demonstrate the capability of our method by allowing users to capture and reconstruct their
3D faces by themselves.
Based on the 3D face model reconstruction, we can analyze the facial expression and
the related emotion in 3D space. We present a novel approach to analyze the facial expressions
from images and a quantitative information visualization scheme for exploring this
type of visual data. From the reconstructed result using NMF part-based morphable 3D face
model, basis parameters and a displacement map are extracted as features for facial emotion
analysis and visualization. Based upon the features, two Support Vector Regressions (SVRs)
are trained to determine the fuzzy Valence-Arousal (VA) values to quantify the emotions.
The continuously changing emotion status can be intuitively analyzed by visualizing the
VA values in VA-space. Our emotion analysis and visualization system, based on 3D NMF
morphable face model, detects expressions robustly from various head poses, face sizes and
lighting conditions, and is fully automatic to compute the VA values from images or a sequence
of video with various facial expressions. To evaluate our novel method, we test our
system on publicly available databases and evaluate the emotion analysis and visualization
results. We also apply our method to quantifying emotion changes during motivational interviews.
These experiments and applications demonstrate effectiveness and accuracy of
our method.
In order to improve the expression recognition accuracy, we present a facial expression
recognition approach with 3D Mesh Convolutional Neural Network (3DMCNN) and a visual
analytics guided 3DMCNN design and optimization scheme. The geometric properties of the
surface is computed using the 3D face model of a subject with facial expressions. Instead of
using regular Convolutional Neural Network (CNN) to learn intensities of the facial images,
we convolve the geometric properties on the surface of the 3D model using 3DMCNN. We
design a geodesic distance-based convolution method to overcome the difficulties raised from
the irregular sampling of the face surface mesh. We further present an interactive visual
analytics for the purpose of designing and modifying the networks to analyze the learned
features and cluster similar nodes in 3DMCNN. By removing low activity nodes in the network,
the performance of the network is greatly improved. We compare our method with the regular CNN-based method by interactively visualizing each layer of the networks and
analyze the effectiveness of our method by studying representative cases. Testing on public
datasets, our method achieves a higher recognition accuracy than traditional image-based
CNN and other 3D CNNs. The presented framework, including 3DMCNN and interactive
visual analytics of the CNN, can be extended to other applications
CPSOR-GCN: A Vehicle Trajectory Prediction Method Powered by Emotion and Cognitive Theory
Active safety systems on vehicles often face problems with false alarms. Most
active safety systems predict the driver's trajectory with the assumption that
the driver is always in a normal emotion, and then infer risks. However, the
driver's trajectory uncertainty increases under abnormal emotions. This paper
proposes a new trajectory prediction model: CPSOR-GCN, which predicts vehicle
trajectories under abnormal emotions. At the physical level, the interaction
features between vehicles are extracted by the physical GCN module. At the
cognitive level, SOR cognitive theory is used as prior knowledge to build a
Dynamic Bayesian Network (DBN) structure. The conditional probability and state
transition probability of nodes from the calibrated SOR-DBN quantify the causal
relationship between cognitive factors, which is embedded into the cognitive
GCN module to extract the characteristics of the influence mechanism of
emotions on driving behavior. The CARLA-SUMO joint driving simulation platform
was built to develop dangerous pre-crash scenarios. Methods of recreating
traffic scenes were used to naturally induce abnormal emotions. The experiment
collected data from 26 participants to verify the proposed model. Compared with
the model that only considers physical motion features, the prediction accuracy
of the proposed model is increased by 68.70%. Furthermore,considering the
SOR-DBN reduces the prediction error of the trajectory by 15.93%. Compared with
other advanced trajectory prediction models, the results of CPSOR-GCN also have
lower errors. This model can be integrated into active safety systems to better

深層学習に基づく感情会話分析に関する研究
Owning the capability to express specific emotions by a chatbot during a conversation is one of the key parts of artificial intelligence, which has an intuitive and quantifiable impact on the improvement of chatbot’s usability and user satisfaction. Enabling machines to emotion recognition in conversation is challenging, mainly because the information in human dialogue innately conveys emotions by long-term experience, abundant knowledge, context, and the intricate patterns between the affective states. Recently, many studies on neural emotional conversational models have been conducted. However, enabling the chatbot to control what kind of emotion to respond to upon its own characters in conversation is still underexplored. At this stage, people are no longer satisfied with using a dialogue system to solve specific tasks, and are more eager to achieve spiritual communication. In the chat process, if the robot can perceive the user's emotions and can accurately process them, it can greatly enrich the content of the dialogue and make the user empathize.
In the process of emotional dialogue, our ultimate goal is to make the machine understand human emotions and give matching responses. Based on these two points, this thesis explores and in-depth emotion recognition in conversation task and emotional dialogue generation task. In the past few years, although considerable progress has been made in emotional research in dialogue, there are still some difficulties and challenges due to the complex nature of human emotions. The key contributions in this thesis are summarized as below:
(1) Researchers have paid more attention to enhancing natural language models with knowledge graphs these days, since knowledge graph has gained a lot of systematic knowledge. A large number of studies had shown that the introduction of external commonsense knowledge is very helpful to improve the characteristic information. We address the task of emotion recognition in conversations using external knowledge to enhance semantics. In this work, we employ an external knowledge graph ATOMIC to extract the knowledge sources. We proposed KES model, a new framework that incorporates different elements of external knowledge and conversational semantic role labeling, where build upon them to learn interactions between interlocutors participating in a conversation. The conversation is a sequence of coherent and orderly discourses. For neural networks, the capture of long-range context information is a weakness. We adopt Transformer a structure composed of self-attention and feed forward neural network, instead of the traditional RNN model, aiming at capturing remote context information. We design a self-attention layer specialized for enhanced semantic text features with external commonsense knowledge. Then, two different networks composed of LSTM are responsible for tracking individual internal state and context external state. In addition, the proposed model has experimented on three datasets in emotion detection in conversation. The experimental results show that our model outperforms the state-of-the-art approaches on most of the tested datasets.
(2) We proposed an emotional dialogue model based on Seq2Seq, which is improved from three aspects: model input, encoder structure, and decoder structure, so that the model can generate responses with rich emotions, diversity, and context. In terms of model input, emotional information and location information are added based on word vectors. In terms of the encoder, the proposed model first encodes the current input and sentence sentiment to generate a semantic vector, and additionally encodes the context and sentence sentiment to generate a context vector, adding contextual information while ensuring the independence of the current input. On the decoder side, attention is used to calculate the weights of the two semantic vectors separately and then decode, to fully integrate the local emotional semantic information and the global emotional semantic information. We used seven objective evaluation indicators to evaluate the model's generation results, context similarity, response diversity, and emotional response. Experimental results show that the model can generate diverse responses with rich sentiment, contextual associations
Emotion and Virality of Food Safety Risk Communication Messages on Social Media
This study investigates how the emotional tone of food safety risk communication messages predicts message virality on social media. Through a professional Internet content tracking service, we gathered news articles written about the 2018 romaine lettuce recall published online between October 30th and November 29th, 2018. We retrieved the number of times each article was shared on Twitter and Pinterest, and the number of engagements (shares, likes, and comments) for each article on Facebook and Reddit. We randomly selected 10% of the articles (n = 377) and characterized the emotional tone of each article using machine learning, including emotional characteristics such as discrete emotions, emotional valence, arousal, and dominance. Conveying negative valence, low arousal, and high dominance, as well as anger and sadness emotions were associated with greater virality of articles on social media.
