Online Isotonic Regression
We consider the online version of the isotonic regression problem. Given a
set of linearly ordered points (e.g., on the real line), the learner must
predict labels sequentially at adversarially chosen positions and is evaluated
by her total squared loss compared against the best isotonic (non-decreasing)
function in hindsight. We survey several standard online learning algorithms
and show that none of them achieve the optimal regret exponent; in fact, most
of them (including Online Gradient Descent, Follow the Leader and Exponential
Weights) incur linear regret. We then prove that the Exponential Weights
algorithm played over a covering net of isotonic functions has a regret bounded
by and present a matching
lower bound on regret. We provide a computationally efficient version of this
algorithm. We also analyze the noise-free case, in which the revealed labels
are isotonic, and show that the bound can be improved to or even to
(when the labels are revealed in isotonic order). Finally, we extend the
analysis beyond squared loss and give bounds for entropic loss and absolute

Combining Adversarial Guarantees and Stochastic Fast Rates in Online Learning
We consider online learning algorithms that guarantee worst-case regret rates
in adversarial environments (so they can be deployed safely and will perform
robustly), yet adapt optimally to favorable stochastic environments (so they
will perform well in a variety of settings of practical importance). We
quantify the friendliness of stochastic environments by means of the well-known
Bernstein (a.k.a. generalized Tsybakov margin) condition. For two recent
algorithms (Squint for the Hedge setting and MetaGrad for online convex
optimization) we show that the particular form of their data-dependent
individual-sequence regret guarantees implies that they adapt automatically to
the Bernstein parameters of the stochastic environment. We prove that these
algorithms attain fast rates in their respective settings both in expectation
and with high probability
Adaptive Online Prediction by Following the Perturbed Leader
When applying aggregating strategies to Prediction with Expert Advice, the
learning rate must be adaptively tuned. The natural choice of
sqrt(complexity/current loss) renders the analysis of Weighted Majority
derivatives quite complicated. In particular, for arbitrary weights there have
been no results proven so far. The analysis of the alternative "Follow the
Perturbed Leader" (FPL) algorithm from Kalai & Vempala (2003) (based on
Hannan's algorithm) is easier. We derive loss bounds for adaptive learning rate
and both finite expert classes with uniform weights and countable expert
classes with arbitrary weights. For the former setup, our loss bounds match the
best known results so far, while for the latter our results are new.Comment: 25 page
PAC-Bayes and Domain Adaptation
We provide two main contributions in PAC-Bayesian theory for domain
adaptation where the objective is to learn, from a source distribution, a
well-performing majority vote on a different, but related, target distribution.
Firstly, we propose an improvement of the previous approach we proposed in
Germain et al. (2013), which relies on a novel distribution pseudodistance
based on a disagreement averaging, allowing us to derive a new tighter domain
adaptation bound for the target risk. While this bound stands in the spirit of
common domain adaptation works, we derive a second bound (introduced in Germain
et al., 2016) that brings a new perspective on domain adaptation by deriving an
upper bound on the target risk where the distributions' divergence-expressed as
a ratio-controls the trade-off between a source error measure and the target
voters' disagreement. We discuss and compare both results, from which we obtain
PAC-Bayesian generalization bounds. Furthermore, from the PAC-Bayesian
specialization to linear classifiers, we infer two learning algorithms, and we

Relax and Localize: From Value to Algorithms
We show a principled way of deriving online learning algorithms from a
minimax analysis. Various upper bounds on the minimax value, previously thought
to be non-constructive, are shown to yield algorithms. This allows us to
seamlessly recover known methods and to derive new ones. Our framework also
captures such "unorthodox" methods as Follow the Perturbed Leader and the R^2
forecaster. We emphasize that understanding the inherent complexity of the
learning problem leads to the development of algorithms.
We define local sequential Rademacher complexities and associated algorithms
that allow us to obtain faster rates in online learning, similarly to
statistical learning theory. Based on these localized complexities we build a
general adaptive method that can take advantage of the suboptimality of the
observed sequence.
We present a number of new algorithms, including a family of randomized
methods that use the idea of a "random playout". Several new versions of the
Follow-the-Perturbed-Leader algorithms are presented, as well as methods based
on the Littlestone's dimension, efficient methods for matrix completion with
trace norm, and algorithms for the problems of transductive learning and
prediction with static experts
Learning Kernel-Based Halfspaces with the Zero-One Loss
We describe and analyze a new algorithm for agnostically learning
kernel-based halfspaces with respect to the \emph{zero-one} loss function.
Unlike most previous formulations which rely on surrogate convex loss functions
(e.g. hinge-loss in SVM and log-loss in logistic regression), we provide finite
time/sample guarantees with respect to the more natural zero-one loss function.
The proposed algorithm can learn kernel-based halfspaces in worst-case time
\poly(\exp(L\log(L/\epsilon))), for \emph{any} distribution, where is a
Lipschitz constant (which can be thought of as the reciprocal of the margin),
and the learned classifier is worse than the optimal halfspace by at most
. We also prove a hardness result, showing that under a certain
cryptographic assumption, no algorithm can learn kernel-based halfspaces in
