    Probabilistic Graphical Models on Multi-Core CPUs using Java 8

    In this paper, we discuss software design issues related to the development of parallel computational intelligence algorithms on multi-core CPUs, using the new Java 8 functional programming features. In particular, we focus on probabilistic graphical models (PGMs) and present the parallelisation of a collection of algorithms that deal with inference and learning of PGMs from data. Namely, maximum likelihood estimation, importance sampling, and greedy search for solving combinatorial optimisation problems. Through these concrete examples, we tackle the problem of defining efficient data structures for PGMs and parallel processing of same-size batches of data sets using Java 8 features. We also provide straightforward techniques to code parallel algorithms that seamlessly exploit multi-core processors. The experimental analysis, carried out using our open source AMIDST (Analysis of MassIve Data STreams) Java toolbox, shows the merits of the proposed solutions.Comment: Pre-print version of the paper presented in the special issue on Computational Intelligence Software at IEEE Computational Intelligence Magazine journa

    A Review of Inference Algorithms for Hybrid Bayesian Networks

    Hybrid Bayesian networks have received an increasing attention during the last years. The difference with respect to standard Bayesian networks is that they can host discrete and continuous variables simultaneously, which extends the applicability of the Bayesian network framework in general. However, this extra feature also comes at a cost: inference in these types of models is computationally more challenging and the underlying models and updating procedures may not even support closed-form solutions. In this paper we provide an overview of the main trends and principled approaches for performing inference in hybrid Bayesian networks. The methods covered in the paper are organized and discussed according to their methodological basis. We consider how the methods have been extended and adapted to also include (hybrid) dynamic Bayesian networks, and we end with an overview of established software systems supporting inference in these types of models

    Probabilistic techniques in semantic mapping for mobile robotics

    Los mapas semánticos son representaciones del mundo que permiten a un robot entender no sólo los aspectos espaciales de su lugar de trabajo, sino también el significado de sus elementos (objetos, habitaciones, etc.) y como los humanos interactúan con ellos (e.g. funcionalidades, eventos y relaciones). Para conseguirlo, un mapa semántico añade a las representaciones puramente espaciales, tales como mapas geométricos o topológicos, meta-información sobre los tipos de elementos y relaciones que pueden encontrarse en el entorno de trabajo. Esta meta-información, denominada conocimiento semántico o de sentido común, se codifica típicamente en Bases de Conocimiento. Un ejemplo de este tipo de información podría ser: "los frigoríficos son objetos grandes, con forma rectangular, colocados normalmente en las cocinas, y que pueden contener comida perecedera y medicación". Codificar y manejar este conocimiento semántico permite al robot razonar acerca de la información obtenida de un cierto lugar de trabajo, así como inferir nueva información con el fin de ejecutar eficientemente tareas de alto nivel como "¡hola robot! llévale la medicación a la abuela, por favor". La presente tesis propone la utilización de técnicas probabilísticas para construir y mantener mapas semánticos, lo cual presenta tres ventajas principales en comparación con los enfoques tradicionales: i) permite manejar incertidumbre (proveniente de los sensores imprecisos del robot y de los modelos empleados), ii) provee representaciones del entorno coherentes por medio del aprovechamiento de las relaciones contextuales entre los elementos observados (e.g. los frigoríficos usualmente se encuentran en las cocinas) desde un punto de vista holístico, y iii) produce valores de certidumbre que reflejan el grado de exactitud de la comprensión del robot acerca de su entorno. Específicamente, las contribuciones presentadas pueden agruparse en dos temas principales. El primer conjunto de contribuciones se basa en el problema del reconocimiento de objetos y/o habitaciones, ya que los sistemas de mapeo semántico deben contar con algoritmos de reconocimiento fiables para la construcción de representaciones válidas. Para ello se ha explorado la utilización de Modelos Gráficos Probabilísticos (Probabilistic Graphical Models o PGMs en inglés) con el fin de aprovechar las relaciones de contexto entre objetos y/o habitaciones a la vez que se maneja la incertidumbre inherente al problema de reconocimiento, y el empleo de Bases de Conocimiento para mejorar su desempeño de distintos modos, e.g., detectando resultados incoherentes, proveyendo información a priori, reduciendo la complejidad de los algoritmos de inferencia probabilística, generando ejemplos de entrenamiento sintéticos, habilitando el aprendizaje a partir de experiencias pasadas, etc. El segundo grupo de contribuciones acomoda los resultados probabilísticos provenientes de los algoritmos de reconocimiento desarrollados en una nueva representación semántica, denominada Multiversal Semantic Map (MvSmap). Este mapa gestiona múltiples interpretaciones del espacio de trabajo del robot, llamadas universos, los cuales son anotados con la probabilidad de ser los correctos de acuerdo con el conocimiento actual del robot. Así, este enfoque proporciona una creencia fundamentada sobre la exactitud de la comprensión del robot sobre su entorno, lo que le permite operar de una manera más eficiente y coherente. Los algoritmos probabilísticos propuestos han sido testeados concienzudamente y comparados con otros enfoques actuales e innovadores empleando conjuntos de datos del estado del arte. De manera adicional, esta tesis también contribuye con dos conjuntos de datos, UMA-Offices and Robot@Home, los cuales contienen información sensorial capturada en distintos entornos de oficinas y casas, así como dos herramientas software, la librería Undirected Probabilistic Graphical Models in C++ (UPGMpp), y el conjunto de herramientas Object Labeling Toolkit (OLT), para el trabajo con Modelos Gráficos Probabilísticos y el procesamiento de conjuntos de datos respectivamente

    Generalised temporal network inference

    openNetwork inference is becoming increasingly central in the analysis of complex phenomena as it allows to obtain understandable models of entities interactions. Among the many possible graphical models, Markov Random Fields are widely used as they are strictly connected to a probability distribution assumption that allow to model a variety of different data. The inference of such models can be guided by two priors: sparsity and non-stationarity. In other words, only few connections are necessary to explain the phenomenon under observation and, as the phenomenon evolves, the underlying connections that explain it may change accordingly. This thesis contains two general methods for the inference of temporal graphical models that deeply rely on the concept of temporal consistency, i.e., the underlying structure of the system is similar (i.e., consistent) in time points that model the same behaviour (i.e., are dependent). The first contribution is a model that allows to be flexible in terms of probability assumption, temporal consistency, and dependency. The second contribution studies the previously introduces model in the presence of Gaussian partially un-observed data. Indeed, it is necessary to explicitly tackle the presence of un-observed data in order to avoid introducing misrepresentations in the inferred graphical model. All extensions are coupled with fast and non-trivial minimisation algorithms that are extensively validate on synthetic and real-world data. Such algorithms and experiments are implemented in a large and well-designed Python library that comprehends many tools for the modelling of multivariate data. Lastly, all the presented models have many hyper-parameters that need to be tuned on data.     Exploring a Modelling Method with Semantic Link Network and Resource Space Model

    To model the complex reality, it is necessary to develop a powerful semantic model. A rational approach is to integrate a relational view and a multi-dimensional view of reality. The Semantic Link Network (SLN) is a semantic model based on a relational view and the Resource Space Model (RSM) is a multi-dimensional view for managing, sharing and specifying versatile resources with a universal resource observation. The motivation of this research consists of four aspects: (1) verify the roles of Semantic Link Network and the Resource Space Model in effectively managing various types of resources, (2) demonstrate the advantages of the Resource Space Model and Semantic Link Network, (3) uncover the rules through applications, and (4) generalize a methodology for modelling complex reality and managing various resources. The main contribution of this work consists of the following aspects: 1. A new text summarization method is proposed by segmenting a document into clauses based on semantic discourse relations and ranking and extracting the informative clauses according to their relations and roles. The Resource Space Model benefits from using semantic link network, ranking techniques and language characteristics. Compared with other summarization approaches, the proposed approach based on semantic relations achieves a higher recall score. Three implications are obtained from this research. 2. An SLN-based model for recommending research collaboration is proposed by extracting a semantic link network of different types of semantic nodes and different types of semantic links from scientific publications. Experiments on three data sets of scientific publications show that the model achieves a good performance in predicting future collaborators. This research further unveils that different semantic links play different roles in representing texts. 3. A multi-dimensional method for managing software engineering processes is developed. Software engineering processes are mapped into multiple dimensions for supporting analysis, development and maintenance of software systems. It can be used to uniformly classify and manage software methods and models through multiple dimensions so that software systems can be developed with appropriate methods. Interfaces for visualizing Resource Space Model are developed to support the proposed method by keeping the consistency among interface, the structure of model and faceted navigation

    A PROBABILISTIC APPROACH TO THE CONSTRUCTION OF A MULTIMODAL AFFECT SPACE

    Understanding affective signals from others is crucial for both human-human and human-agent interaction. The automatic analysis of emotion is by and large addressed as a pattern recognition problem which grounds in early psychological theories of emotion. Suitable features are first extracted and then used as input to classification (discrete emotion recognition) or regression (continuous affect detection). In this thesis, differently from many computational models in the literature, we draw on a simulationist approach to the analysis of facially displayed emotions - e.g., in the course of a face-to-face interaction between an expresser and an observer. At the heart of such perspective lies the enactment of the perceived emotion in the observer. We propose a probabilistic framework based on a deep latent representation of a continuous affect space, which can be exploited for both the estimation and the enactment of affective states in a multimodal space. Namely, we consider the observed facial expression together with physiological activations driven by internal autonomic activity. The rationale behind the approach lies in the large body of evidence from affective neuroscience showing that when we observe emotional facial expressions, we react with congruent facial mimicry. Further, in more complex situations, affect understanding is likely to rely on a comprehensive representation grounding the reconstruction of the state of the body associated with the displayed emotion. We show that our approach can address such problems in a unified and principled perspective, thus avoiding ad hoc heuristics while minimising learning efforts. Moreover, our model improves the inferred belief through the adoption of an inner loop of measurements and predictions within the central affect state-space, that realise the dynamics of the affect enactment.
