    Probabilistic Methodology and Techniques for Artefact Conception and Development

    The purpose of this paper is to make a state of the art on probabilistic methodology and techniques for artefact conception and development. It is the 8th deliverable of the BIBA (Bayesian Inspired Brain and Artefacts) project. We first present the incompletness problem as the central difficulty that both living creatures and artefacts have to face: how can they perceive, infer, decide and act efficiently with incomplete and uncertain knowledge?. We then introduce a generic probabilistic formalism called Bayesian Programming. This formalism is then used to review the main probabilistic methodology and techniques. This review is organized in 3 parts: first the probabilistic models from Bayesian networks to Kalman filters and from sensor fusion to CAD systems, second the inference techniques and finally the learning and model acquisition and comparison methodologies. We conclude with the perspectives of the BIBA project as they rise from this state of the art

    Optimizing city-scale traffic through modeling observations of vehicle movements

    The capability of traffic-information systems to sense the movement of millions of users and offer trip plans through mobile phones has enabled a new way of optimizing city traffic dynamics, turning transportation big data into insights and actions in a closed-loop and evaluating this approach in the real world. Existing research has applied dynamic Bayesian networks and deep neural networks to make traffic predictions from floating car data, utilized dynamic programming and simulation approaches to identify how people normally travel with dynamic traffic assignment for policy research, and introduced Markov decision processes and reinforcement learning to optimally control traffic signals. However, none of these works utilized floating car data to suggest departure times and route choices in order to optimize city traffic dynamics. In this paper, we present a study showing that floating car data can lead to lower average trip time, higher on-time arrival ratio, and higher Charypar-Nagel score compared with how people normally travel. The study is based on optimizing a partially observable discrete-time decision process and is evaluated in one synthesized scenario, one partly synthesized scenario, and three real-world scenarios. This study points to the potential of a "living lab" approach where we learn, predict, and optimize behaviors in the real world

    Using Mean Embeddings for State Estimation and Reinforcement Learning

    To act in complex, high-dimensional environments, autonomous systems require versatile state estimation techniques and compact state representations. State estimation is crucial when the system only has access to stochastic measurements or partial observations. Furthermore, in combination with models of the system such techniques allow to predict the future which enables the system to asses the outcome of possible decisions. Compact state representations alleviate the curse of dimensionality by distilling the important information from high-dimensional observations. Due to noisy sensory information and non-perfect models of the system, estimates of the state never reflect the true state perfectly but are always subject to errors. The natural choice to incorporate the uncertainty about the state estimate is to use a probability distribution as representation. This results in the so called belief state. High-dimensional observations, for example images, often contain much less information than conveyed by their dimensionality. But also if all the information is necessary to describe the state of the system—for example, think of the state of a swarm with the positions of all agents—a less complex description might be a sufficient representation. In such situations, finding the generative distribution that explains the state would give a much more compact while informative representation. Traditionally, parametric distributions have been used as state representations such as most prevalently the Gaussian distribution. However, in many cases a unimodal distribution might not be sufficient to represent the belief state. Using multi-modal probability distributions, instead, requires more advanced approaches such as mixture models or particle-based Monte Carlo methods. Learning mixture models is however not straight-forward and often results in locally optimal solutions. Similarly, maintaining a good population of particles during inference is a complicated and cumbersome process. A third approach is kernel density estimation which is located at the intersection of mixture models and particle-based approaches. Still, performing inference with any of these approaches requires heuristics that lead to poor performance and a limited scalability to higher dimensional spaces. A recent technique that alleviates this problem are the embeddings of probability distributions into reproducing kernel Hilbert spaces (RKHS). Conditional distributions can be embedded as operators based on which a framework for inference has been presented that allows to apply the sum rule, the product rule and Bayes’ rule entirely in Hilbert space. Using sample based estimators and the kernel-trick of the representer theorem allows to represent the operations as vector-matrix manipulations. The contributions of this thesis are based on or inspired by the embeddings of distributions into reproducing kernel Hilbert spaces. In the first part of this thesis, I propose additions to the framework for nonparametric inference that allow the inference operators to scale more gracefully with the number of samples in the training set. The first contribution is an alternative approach to the conditional embedding operator formulated as a least-squares problem i which allows to use only a subset of the data as representation while using the full data set to learn the conditional operator. I call this operator the subspace conditional embedding operator. Inspired by the least-squares derivations of the Kalman filter, I furthermore propose an alternative operator for Bayesian updates in Hilbert space, the kernel Kalman rule. This alternative approach is numerically more robust than the kernel Bayes rule presented in the framework for non-parametric inference and scales better with the number of samples. Based on the kernel Kalman rule, I derive the kernel Kalman filter and the kernel forward-backward smoother to perform state estimation, prediction and smoothing based on Hilbert space embeddings of the belief state. This representation is able to capture multi-modal distributions and inference resolves--due to the kernel trick--into easy matrix manipulations. In the second part of this thesis, I propose a representation for large sets of homogeneous observations. Specifically, I consider the problem of learning a controller for object assembly and object manipulation with a robotic swarm. I assume a swarm of homogeneous robots that are controlled by a common input signal, e.g., the gradient of a light source or a magnetic field. Learning policies for swarms is a challenging problem since the state space grows with the number of agents and becomes quickly very high dimensional. Furthermore, the exact number of agents and the order of the agents in the observation is not important to solve the task. To approach this issue, I propose the swarm kernel which uses a Hilbert space embedding to represent the swarm. Instead of the exact positions of the agents in the swarm, the embedding estimates the generative distribution behind the swarm configuration. The specific agent positions are regarded as samples of this distribution. Since the swarm kernel compares the embeddings of distributions, it can compare swarm configurations with varying numbers of individuals and is invariant to the permutation of the agents. I present a hierarchical approach for solving the object manipulation task where I assume a high-level object assembly policy as given. To learn the low-level object pushing policy, I use the swarm kernel with an actor-critic policy search method. The policies which I learn in simulation can be directly transferred to a real robotic system. In the last part of this thesis, I investigate how we can employ the idea of kernel mean embeddings to deep reinforcement learning. As in the previous part, I consider a variable number of homogeneous observations—such as robot swarms where the number of agents can change. Another example is the representation of 3D structures as point clouds. The number of points in such clouds can vary strongly and the order of the points in a vectorized representation is arbitrary. The common architectures for neural networks have a fixed structure that requires that the dimensionality of inputs and outputs is known in advance. A variable number of inputs can only be processed by applying tricks. To approach this problem, I propose the deep M-embeddings which are inspired by the kernel mean embeddings. The deep M-embeddings provide a network structure to compute a fixed length representation from a variable number of inputs. Additionally, the deep M-embeddings exploit the homogeneous nature of the inputs to reduce the number of parameters in the network and, thus, make the learning easier. Similar to the swarm kernel, the policies learned with the deep M-embeddings can be transferred to different swarm sizes and different number of objects in the environment without further learning

    Holistic Temporal Situation Interpretation for Traffic Participant Prediction

    For a profound understanding of traffic situations including a prediction of traf- fic participants’ future motion, behaviors and routes it is crucial to incorporate all available environmental observations. The presence of sensor noise and depen- dency uncertainties, the variety of available sensor data, the complexity of large traffic scenes and the large number of different estimation tasks with diverging requirements require a general method that gives a robust foundation for the de- velopment of estimation applications. In this work, a general description language, called Object-Oriented Factor Graph Modeling Language (OOFGML), is proposed, that unifies formulation of esti- mation tasks from the application-oriented problem description via the choice of variable and probability distribution representation through to the inference method definition in implementation. The different language properties are dis- cussed theoretically using abstract examples. The derivation of explicit application examples is shown for the automated driv- ing domain. A domain-specific ontology is defined which forms the basis for four exemplary applications covering the broad spectrum of estimation tasks in this domain: Basic temporal filtering, ego vehicle localization using advanced interpretations of perceived objects, road layout perception utilizing inter-object dependencies and finally highly integrated route, behavior and motion estima- tion to predict traffic participant’s future actions. All applications are evaluated as proof of concept and provide an example of how their class of estimation tasks can be represented using the proposed language. The language serves as a com- mon basis and opens a new field for further research towards holistic solutions for automated driving

    Extending expectation propagation for graphical models

However, efficient inference and learning techniques for graphical models are needed to handle complex models, such as hybrid Bayesian networks. This thesis proposes extensions of expectation propagation, a powerful generalization of loopy belief propagation, to develop efficient Bayesian inference and learning algorithms for graphical models. The first two chapters of the thesis present inference algorithms for generative graphical models, and the next two propose learning algorithms for conditional graphical models. First, the thesis proposes a window-based EP smoothing algorithm for online estimation on hybrid dynamic Bayesian networks. For an application in wireless communications, window-based EP smoothing achieves estimation accuracy comparable to sequential Monte Carlo methods, but with less than one-tenth computational cost. Second, it develops a new method that combines tree-structured EP approximations with the junction tree for inference on loopy graphs. This new method saves computation and memory by propagating messages only locally to a subgraph when processing each edge in the entire graph. Using this local propagation scheme, this method is not only more accurate, but also faster than loopy belief propagation and structured variational methods. Third, it proposes predictive automatic relevance determination (ARD) to enhance classification accuracy in the presence of irrelevant features. ARD is a Bayesian technique for feature selection.(cont.) The thesis discusses the overfitting problem associated with ARD, and proposes a method that optimizes the estimated predictive performance, instead of maximizing the model evidence. For a gene expression classification problem, predictive ARD outperforms previous methods, including traditional ARD as well as support vector machines combined with feature selection techniques. Finally, it presents Bayesian conditional random fields (BCRFs) for classifying interdependent and structured data, such as sequences, images or webs. BCRFs estimate the posterior distribution of model parameters and average prediction over this posterior to avoid overfitting. For the problems of frequently-asked-question labeling and of ink recognition, BCRFs achieve superior prediction accuracy over conditional random fields trained with maximum likelihood and maximum a posteriori criteria.by Yuan Qi.Ph.D

    The Dopaminergic Midbrain Encodes the Expected Certainty about Desired Outcomes

    Dopamine plays a key role in learning; however, its exact function in decision making and choice remains unclear. Recently, we proposed a generic model based on active (Bayesian) inference wherein dopamine encodes the precision of beliefs about optimal policies. Put simply, dopamine discharges reflect the confidence that a chosen policy will lead to desired outcomes. We designed a novel task to test this hypothesis, where subjects played a "limited offer" game in a functional magnetic resonance imaging experiment. Subjects had to decide how long to wait for a high offer before accepting a low offer, with the risk of losing everything if they waited too long. Bayesian model comparison showed that behavior strongly supported active inference, based on surprise minimization, over classical utility maximization schemes. Furthermore, midbrain activity, encompassing dopamine projection neurons, was accurately predicted by trial-by-trial variations in model-based estimates of precision. Our findings demonstrate that human subjects infer both optimal policies and the precision of those inferences, and thus support the notion that humans perform hierarchical probabilistic Bayesian inference. In other words, subjects have to infer both what they should do as well as how confident they are in their choices, where confidence may be encoded by dopaminergic firing

    Lifted Bayesian filtering in multi-entity systems

    This thesis focuses on Bayesian filtering for systems that consist of multiple, interacting entites (e.g. agents or objects), which can naturally be described by Multiset Rewriting Systems (MRSs). The main insight is that the state space that is underling an MRS exhibits a certain symmetry, which can be exploited to increase inference efficiency. We provide an efficient, lifted filtering algorithm, which is able to achieve a factorial reduction in space and time complexity, compared to conventional, ground filtering.Diese Arbeit betrachtet Bayes'sche Filter in Systemen, die aus mehreren, interagierenden Entitäten (z.B.     A Survey of Knowledge-based Sequential Decision Making under Uncertainty

    Reasoning with declarative knowledge (RDK) and sequential decision-making (SDM) are two key research areas in artificial intelligence. RDK methods reason with declarative domain knowledge, including commonsense knowledge, that is either provided a priori or acquired over time, while SDM methods (probabilistic planning and reinforcement learning) seek to compute action policies that maximize the expected cumulative utility over a time horizon; both classes of methods reason in the presence of uncertainty. Despite the rich literature in these two areas, researchers have not fully explored their complementary strengths. In this paper, we survey algorithms that leverage RDK methods while making sequential decisions under uncertainty. We discuss significant developments, open problems, and directions for future work

    Belief-space Planning for Active Visual SLAM in Underwater Environments.

    Autonomous mobile robots operating in a priori unknown environments must be able to integrate path planning with simultaneous localization and mapping (SLAM) in order to perform tasks like exploration, search and rescue, inspection, reconnaissance, target-tracking, and others. This level of autonomy is especially difficult in underwater environments, where GPS is unavailable, communication is limited, and environment features may be sparsely- distributed. In these situations, the path taken by the robot can drastically affect the performance of SLAM, so the robot must plan and act intelligently and efficiently to ensure successful task completion. This document proposes novel research in belief-space planning for active visual SLAM in underwater environments. Our motivating application is ship hull inspection with an autonomous underwater robot. We design a Gaussian belief-space planning formulation that accounts for the randomness of the loop-closure measurements in visual SLAM and serves as the mathematical foundation for the research in this thesis. Combining this planning formulation with sampling-based techniques, we efficiently search for loop-closure actions throughout the environment and present a two-step approach for selecting revisit actions that results in an opportunistic active SLAM framework. The proposed active SLAM method is tested in hybrid simulations and real-world field trials of an underwater robot performing inspections of a physical modeling basin and a U.S. Coast Guard cutter. To reduce computational load, we present research into efficient planning by compressing the representation and examining the structure of the underlying SLAM system. We propose the use of graph sparsification methods online to reduce complexity by planning with an approximate distribution that represents the original, full pose graph. We also propose the use of the Bayes tree data structure—first introduced for fast inference in SLAM—to perform efficient incremental updates when evaluating candidate plans that are similar. As a final contribution, we design risk-averse objective functions that account for the randomness within our planning formulation. We show that this aversion to uncertainty in the posterior belief leads to desirable and intuitive behavior within active SLAM.PhDMechanical EngineeringUniversity of Michigan, Horace H.
