    Optimization Modeling and Machine Learning Techniques Towards Smarter Systems and Processes

    The continued penetration of technology in our daily lives has led to the emergence of the concept of Internet-of-Things (IoT) systems and networks. An increasing number of enterprises and businesses are adopting IoT-based initiatives expecting that it will result in higher return on investment (ROI) [1]. However, adopting such technologies poses many challenges. One challenge is improving the performance and efficiency of such systems by properly allocating the available and scarce resources [2, 3]. A second challenge is making use of the massive amount of data generated to help make smarter and more informed decisions [4]. A third challenge is protecting such devices and systems given the surge in security breaches and attacks in recent times [5]. To that end, this thesis proposes the use of various optimization modeling and machine learning techniques in three different systems; namely wireless communication systems, learning management systems (LMSs), and computer network systems. In par- ticular, the first part of the thesis posits optimization modeling techniques to improve the aggregate throughput and power efficiency of a wireless communication network. On the other hand, the second part of the thesis proposes the use of unsupervised machine learning clustering techniques to be integrated into LMSs to identify unengaged students based on their engagement with material in an e-learning environment. Lastly, the third part of the thesis suggests the use of exploratory data analytics, unsupervised machine learning clustering, and supervised machine learning classification techniques to identify malicious/suspicious domain names in a computer network setting. The main contributions of this thesis can be divided into three broad parts. The first is developing optimal and heuristic scheduling algorithms that improve the performance of wireless systems in terms of throughput and power by combining wireless resource virtualization with device-to-device and machine-to-machine communications. The second is using unsupervised machine learning clustering and association algorithms to determine an appropriate engagement level model for blended e-learning environments and study the relationship between engagement and academic performance in such environments. The third is developing a supervised ensemble learning classifier to detect malicious/suspicious domain names that achieves high accuracy and precision

    Auction-Based Efficient Online Incentive Mechanism Designs in Wireless Networks

    Recently, wide use of mobile devices and applications, such as YouTube and Twitter, has facilitated every aspect of our daily lives. Meanwhile, it has also posed great challenges to enable resource-demanding users to successfully access networks. Thus, in order to enlarge network capacity and fully make use of vacant resources, new communication architectures emerge, such as D2D communications, edge computing, and crowdsourcing, all of which ask for involvement of end mobile users in assisting transmission, computation, or network management. However, end mobile users are not always willing to actively provide such sharing services if no reimbursements are provided as they need to consume their own computation and communication resources. Besides, since mobile users are not always stationary, they can opt-in and opt-out the network for their own convenience. Thus, an important practical characteristic of wireless networks, i.e., the mobility of mobile users cannot be ignored, which means that the demands of mobile users span over a period of time. As one of promising solutions, the online incentive mechanism design has been introduced in wireless networks in order to motivate the participation of more mobile users under a dynamic environment. In this thesis, with the analyses of each stakeholder's economic payoffs in wireless networks, the auction-based online incentive mechanisms are proposed to achieve resource allocations, participant selections, and payment determinations in two wireless networks, i.e., Crowdsensing and mobile edge computing. In particular, i) an online incentive mechanism is designed to guarantee Quality of Information of each arriving task in mobile crowdsensing networks, followed by an enhanced online strategy which could further improves the competitive ratio; ii) an online incentive mechanism jointly considering communication and computation resource allocations in collaborative edge computing networks is proposed based on the primal-dual theory; iii) to deal with the nonlinear issue in edge computing networks, an nonlinear online incentive mechanism under energy budget constraints of mobile users is designed based on the Maximal-in-Distributional Range framework; and iv) inspired by the recent development of deep learning techniques, a deep incentive mechanism with the budget balance of each mobile user is proposed to maximize the net revenue of service providers by leveraging the multi-task machine learning model. Both theoretical analyses and numerical results demonstrate the effectiveness of the designed mechanisms

    Pricing and Equilibrium Analysis of Network Market Systems

    Markets have been the most successful method of identifying value of goods and services. Both large and small scale markets have gradually been moving into the Internet domain, with increasingly large numbers of diverse participants. In this dissertation, we consider several problems pertaining to equilibria in networked marketplaces under different application scenarios and market sizes. We approach the question of pricing and market design from two perspectives. On the one hand, we desire to understand how self-interested market participants would set prices and respond to prices resulting in certain allocations. On the other hand, we wish to evaluate how best to allocate resources so as to attain efficient equilibria. There might be a gap between these viewpoints, and characterizing this gap is desirable. Our technical approaches follow the number of market participants, and the nature of trades happening in the market. In our first problem, we consider a market of providing communication services at the level of providing Internet transit. Here, the transit Internet Service Provider (ISP) must determine billing volumes and set prices for its customers who are _rms that are content providers, sinks, or subsidiary ISPs. Demand from these customers is variable, and they have different impacts on the resources that the transit ISP needs to provision. Using measured data from several networks, we design a fair and flexible billing scheme that correctly identifies the impact of each customer on the amount of provisioning needed. While the customer set in the first problem is finite, many marketplaces deal with a very large number of agents that each have ephemeral lifetimes. Here, agents arrive, participate in the market for some time, and then vanish. We consider two such markets in such a regime. The first is one of apps on mobile devices that compete against each other for cellular data service, while the second is on service marketplaces wherein many providers compete with each other for jobs that consider both prices and provider reputations while making choices between them. Our goal is to show that a Mean Field Game can be used to accurately approximate these systems, determine how prices are set, and characterize the nature of equilibria in such markets. Finally, we consider efficiency metrics in large scale resource sharing networks in which bilateral exchange of resources is the norm. In particular, we consider peer-to-peer (P2P) file sharing under which peers obtain chunks of a file from each other. Here, contrary to the intuition that chunks must be shared whenever one peer has one of value to another, we show that a measure of suppression is needed to utilize resources efficiently. In particular, we propose a simple and stable algorithm entitled Mode suppression that attains near optimal file sharing times by disallowing the sharing of the most frequent chunks in the system
